Enhancing Multilingual Capabilities of Large Language Models through Self-Distillation from Resource-Rich Languages
Paper · 2024 · Yuanchi Zhang, Yile Wang, Zijun Liu et al.
Summary
LLMs trained mostly on English handle most other languages much worse. The usual remedy is to machine-translate instruction data into the target language and fine-tune on it. The authors argue this approach has three weaknesses: it ignores what the model already does well in its strongest language, it inherits translation noise, and it can erode performance in the source language.
They propose SDRRL (Self-Distillation from Resource-Rich Languages). The model first answers instructions in a resource-rich language such as English. These self-generated answers are mixed with the ground-truth answers to form a transfer set. That set is then rendered into target languages through machine translation and code-switching, and training happens at the sentence level. A small external parallel corpus is added to align the language representations and to offset translation noise.
The method was tested on LLaMA-2-7B and SeaLLM-7B, using either English or French as the language being distilled from. It beat translate-then-SFT and other baselines on comprehension and generation benchmarks, while largely keeping English performance intact. This makes it a cheap way to improve weaker languages without retraining the model.
Key points
- The motivation is data imbalance: in LLaMA-2 pre-training, English tokens outnumber Japanese ones by a factor of 897.
- Evaluation covers 16 languages in total, with English capabilities distilled into 14 others. The benchmarks are BELEBELE (understanding) and FLORES, XL-SUM (ROUGE-L) and MKQA (generation). Baselines are vanilla SFT, T-SFT, CIT and XCOT.
- On MKQA with LLaMA-2, the SDRRL target-language average was 39.38, compared with 37.95 for T-SFT and 36.48 for SFT. Its English average rose to 44.70, compared with 41.62 for SFT.
- On SeaLLM-7B, SDRRL gained +2.39 average points on target languages and kept English performance at the vanilla-SFT level. The baselines lost at least 2.02 points in English.
- The pipeline uses external MT, code-switching tools and WMT22-cometkiwi-da in the translation stage. Case studies show fewer off-target outputs, grammar errors and hallucinations. Code is available at github.com/THUNLP-MT/SDRRL.
