One-Shot Learning as Instruction Data Prospector for Large Language Models
Paper · 2024 · Yunshui Li, Binyuan Hui, Xiaobo Xia et al.
Summary
Instruction tuning datasets keep growing, but larger collections often carry noisy examples, and choosing good subsets usually depends on costly trial-and-error. The authors propose NUGGETS, which uses the model being tuned to rate each candidate instruction example. Each example is placed in the prompt as a single in-context demonstration ahead of a varied anchor set of tasks. The method then checks whether this lowers the model's perplexity on the anchor responses compared with a zero-shot baseline. How often the example helps becomes its "golden score". The idea rests on the view that in-context learning behaves like implicit fine-tuning, which the paper supports with an approximation of self-attention. Using LLaMA as the main base model and evaluating on MT-Bench and Alpaca-Eval, the authors find that fine-tuning on the top 1% of scored examples beats fine-tuning on the whole dataset. The approach needs no external judge such as ChatGPT and no extra annotation. This makes data curation cheaper and adapted to the specific model.
Key points
- Scoring: the golden score compares zero-shot and one-shot completion quality on an anchor set, with each candidate instruction used as the one-shot prompt.
- Data and evaluation: experiments use the Alpaca and Alpaca-GPT4 datasets with LLaMA-7B, evaluated on MT-Bench and Alpaca-Eval. Models trained on Alpaca-GPT4 clearly outperform those trained on Alpaca.
- Top subsets: subsets with golden score above 0.85 performed best, reaching a 72.05% win rate in one reported setting.
- Transfer to other base models: with LLaMA2-7B, the filtered subset scored 34.98 versus 26.47 for the full data. Mistral-7B also improved, though its absolute win rates were low.
- Limitations and code: most experiments are limited to LLaMA-7B. Code is available at github.com/pldlgb/nuggets.
