Select2Reason: Efficient Instruction-Tuning Data Selection for Long-CoT Reasoning

Paper · 2026 · Cehao Yang, Xueyuan Lin, Xiaojun Wu et al.

Summary

Long chain-of-thought (long-CoT) reasoning can be instilled in LLMs cheaply by supervised fine-tuning on traces generated by strong reasoning models. However, these instruction pools are large and expensive to train on, and there has been no automatic way to pick the most useful examples. The authors started from the observation that rethinking cues such as "Wait" or "Alternatively" appear more often in longer traces and in harder problems. Based on this, they built Select2Reason. The framework scores each question's difficulty with a difficulty-aware reward model, measures the length of its deduplicated reasoning trace, and merges the two rankings through a weighted scheme. They applied it to OpenR1-Math (about 196K samples) and fine-tuned Qwen2.5-Math-7B-Instruct on the top 10% of examples. The resulting model is competitive with or better than full-data tuning and strong open models across nine competition-level math benchmarks and four broader reasoning tasks. This matters because it makes long-CoT tuning considerably cheaper and easy to reproduce.

Key points

  • The 10% subset performs on par with or better than OpenR1-Qwen-7B (94K samples) and DeepSeek-R1-Distill-Qwen-7B (800K samples). It also reduces training time by nearly 75% compared with the full pool.
  • Trace length is a strong heuristic on its own. In the authors' tests, the longest-trace subsets consistently outperformed the middle and shortest ones. Short traces sometimes contain empty <think> blocks.
  • The method transfers to the Chinese-DeepSeek-R1-Distill pool (110K samples) without retraining the judge model, with selection inference taking under 3 minutes. The tuned model also uses fewer thinking tokens at inference.
  • The ablations support the design choices:
    • Ranking directly by rethinking-keyword frequency performs worse, for example 0.418 versus 0.433 on AIME24.
    • Using raw, non-deduplicated traces slightly hurts results.
    • Diversity-based uniform sampling does not match the quality of the selected subsets.
  • The authors note several limitations. Experiments cover only medium-scale models, the method relies on existing instruction datasets, and it remains open how reflective reasoning emerges during SFT.
