Long-Short Chain-of-Thought Mixture Supervised Fine-Tuning Eliciting Efficient Reasoning in Large Language Models
Paper · 2025 · Bin Yu, Hang Yuan, Haotian Li et al.
Summary
Distilling chain-of-thought (CoT) traces from large reasoning models such as DeepSeek R1 into ordinary LLMs through SFT teaches them to reason. However, the students also pick up the teacher's habit of overthinking and produce long, repetitive reasoning. The authors propose LS-Mixture SFT to address this at the distillation stage. First, Qwen2.5-72B-Instruct condenses each long reasoning trace from the s1K-1.1 dataset. It is instructed to keep the logical skeleton and key steps, including the self-correction "aha" moments. The condensed traces are then randomly combined with the original long ones to form s1K-mix. Qwen2.5-32B-Instruct is fine-tuned on this mixture, using separate prompts for detailed and brief thinking. At inference, a prompt asks for something in between. The resulting model, s1-mix-32B, is more accurate than a model trained only on long traces and roughly halves output length. The method reuses existing distilled data without new distillation costs, which makes cheaper and faster reasoning models more practical.
Key points
- Resources released: the s1K-mix dataset (long and rewritten short CoT for the 1,000 s1K-1.1 problems) and the s1-mix-32B model, available on GitHub and HuggingFace.
- Accuracy gains over long-only SFT: +2.2% on MATH500, +6.7% on AIME24 and +2% on GPQA, averaging about +2.3%.
- Response length drops by 47.61% on average, and ablations support the value of structure-preserving rewriting.
- Balanced thinking at inference was never explicitly trained. It appears to emerge from mixing long and short examples.
- Limitations: experiments cover only one 32B model and a 1K-example dataset, and the authors did not explore different long/short mixing ratios.
