Harnessing the Reasoning Economy: A Survey of Efficient Reasoning for Large Language Models
Paper · 2025 · Rui Wang, Hongru Wang, Boyang Xue et al.
Summary
Large Reasoning Models such as OpenAI o1, DeepSeek R1 and QwQ solve hard math and coding problems by producing long chains of thought. They tend to spend the same heavy effort on every query. As a result, they waste tokens on easy inputs (overthinking) and sometimes stop too early on hard ones (underthinking). This survey calls the goal of matching compute to task difficulty the "reasoning economy," the best balance between accuracy gained and inference cost paid.
The authors organise the literature along the model lifecycle:
- Causes of inefficiency: data bias and reward hacking.
- Post-training ("supply side"): methods that build efficiency into the model through data, training algorithms and architecture.
- Inference ("demand side"): methods that allocate compute adaptively per query.
The survey also covers multimodal and agentic settings, efficiency benchmarks and interpretability. Its main conclusion is that strong post-training and adaptive test-time control must be combined to approach peak performance at minimal cost. This matters to anyone deploying reasoning LLMs under budget or latency limits.
Key points
- Challenge taxonomy: overly cautious reasoning, superficial reasoning, poor choice of decoding algorithm, and mismatched compute allocation at test time.
- Post-training remedies: curated reasoning data; Long2short RL (separating quality from length, length penalties, process rewards); budget-aware tuning; explicit and implicit CoT compression; recurrent layers and dynamic-depth architectures.
- Evaluation resources: DNA Bench shows LRMs can emit up to 70× more unnecessary tokens. DUMB500 (from ThoughtTerminator) tests calibration on trivially easy problems. A dataset built from NPR Sunday Puzzle Challenges probes reasoning that needs only general knowledge.
- Extensions: multimodal CoT efficiency metrics (relevance rate, reflection quality) and the LaRMA framework, which compares LRMs with ordinary LLMs as agents.
- Paper list: maintained at github.com/DevoAllen/Awesome-Reasoning-Economy-Papers.
