AgentDropout: Dynamic Agent Elimination for Token-Efficient and High-Performance LLM-Based Multi-Agent Collaboration

Paper · 2025 · Zhexuan Wang, Yutong Wang, Xuebo Liu et al.

Summary

Multi-agent systems (MAS) built on LLMs can solve problems collaboratively, but agent-to-agent messaging consumes many tokens. Earlier efficiency methods such as AgentPrune remove communication edges using one fixed pattern for every discussion round, and the same agents take part throughout. Drawing on management research showing that strong teams reassign roles over time, the authors propose AgentDropout. It models a multi-round MAS as a graph whose intra- and inter-round adjacency matrices have trainable weights. Using only a few training samples and a policy-gradient estimate (task utility is non-differentiable), it works in two steps. Node Dropout learns edge weights and removes the least-connected agent in each round. Edge Dropout then retrains the weights and cuts weak links. Graphs used at inference are sampled as DAGs. On reasoning, mathematics and code generation benchmarks, AgentDropout uses fewer tokens than state-of-the-art baselines while scoring higher. Its learned topologies also transfer across related datasets. This makes multi-agent pipelines cheaper without reducing accuracy.

Key points

  • Compared with state-of-the-art methods, AgentDropout reduces prompt tokens by 21.6% and completion tokens by 18.4% on average, and improves average task performance by 1.14.
  • The method has two stages, Node Dropout and Edge Dropout. Edge weights start at 0.5 and are optimized with the unbiased policy-gradient approach of Zhuge et al. (2024). Communication graphs are drawn with the DAGSample algorithm.
  • Domain transfer results: training on the harder AQuA dataset gives a +1.59 average gain over SOTA, and training on the easier MultiArith gives +0.81. More difficult training data appears to produce better generalization.
  • Stated limitations: the evaluation covers a narrow range of task types, agent roles and prompts must be predefined, and token consumption remains fairly high.
  • Code is available at github.com/wangzx1219/AgentDropout.
