ToolEyes: Fine-Grained Evaluation for Tool Learning Capabilities of Large Language Models in Real-world Scenarios

Paper · 2025 · Junjie Ye, Guanyu Li, SongYang Gao et al.

Summary

Most benchmarks for tool use by large language models only check whether a model picks the expected API. That approach works only when correct answers can be fixed in advance, and it reveals little about the skills behind successful tool use. ToolEyes addresses both gaps. The authors define seven realistic scenarios, ranging from text generation and real-time search to application manipulation and financial transactions. They collect real, callable tools into a library documented in the GPT-4 function format. Domain professionals then write user queries, which are manually validated. Instead of comparing outputs against a gold tool sequence, the framework scores the whole interaction on five capabilities: following the required output format, understanding what the user intends, planning its actions, choosing the right tools, and organizing the final answer.

The authors test ten LLMs from three groups: open-source, tool-oriented, and closed-source. The models favour certain scenarios and show weak reasoning abilities for tool use. Surprisingly, larger models sometimes perform worse. The benchmark is useful because it shows where in the tool-use process models break down, beyond end-task accuracy.

Key points

  • Resource scale: the tool library has 568 tools in 41 categories and 95 subcategories. The benchmark spans 7 scenarios (TG, DU, RS, AM, PL, IR, FT) with 382 human-written, manually validated queries. Code and data are released on GitHub (Junjie-Ye/ToolEyes).
  • Evaluated models: ten LLMs across three groups (open-source, tool-oriented, closed-source), including the LLaMA-2-chat and Vicuna-1.5 families at several sizes.
  • Capabilities are tightly linked: intent comprehension and behavior planning correlate at 0.97, so models that understand user goals also tend to plan well.
  • Scaling can hurt: larger chat-tuned models add conversational filler after tool calls, which breaks output parsing. LLaMA-2-chat-70B fails entirely on 91% of test items.
  • Hallucinated tool names: Vicuna-1.5 inserts spurious escape characters into tool and parameter names. The problem is worse in the 13B model, which the authors link to its larger training corpus.
