Vision-Language Models Can Self-Improve Reasoning via Reflection
Paper · 2025 · Kanzhi Cheng, Li YanTao, Fangzhi Xu et al.
Summary
Open multimodal LLMs reason poorly with chain-of-thought (CoT), and annotated multimodal rationales are expensive to collect at scale. The authors present R3V, an iterative self-training framework that builds CoT data from ordinary VQA-style (image, question, answer) sets. In each round, the model samples its own rationales and answers. These are split into positive and negative solutions by checking the final answer. The model is then fine-tuned on several objectives together: SFT on correct solutions, a self-refine loss that teaches it to turn a flawed solution into a correct one, and a self-select loss that teaches it to compare several candidate solutions and pick the right answer. The improved model produces better samples for the next round. Because the model learns self-selection, it can also spend extra computation at inference time by sampling several solutions and choosing among them. Across six multimodal domains, R3V clearly beats GPT-distilled baselines and the STaR baseline. This suggests MLLMs can strengthen their reasoning without manual CoT annotation.
Key points
- R3V improves accuracy by 23%–60% (relative) over GPT-distilled baselines and consistently outperforms STaR. Benchmarks cover charts, geometry, commonsense, science and math, including TabMWP, CLEVR-Math, M3CoT and GeoQA. The main backbones are LLaVA and Qwen-VL.
- Test-time self-selection beats both Test@1 and majority voting, including in OOD settings, and keeps improving as the sample size grows. Gains level off at large sample sizes because of input-length limits.
- The authors manually checked 100 answer-correct solutions per task. Only 8%–70% had fully correct rationales, often because of perception errors such as OCR mistakes. This noise explains why adding DPO to STaR gives little benefit.
- On Qwen2-VL with GeoQA, without GPT-distilled warmup, zero-shot CoT scores 17.11. R3V self-training raises this to 51.72, and test-time selection with N=3 raises it further to 57.96.
