M³CoT: A Novel Benchmark for Multi-Domain Multi-step Multi-modal Chain-of-Thought
Paper · 2024 · Qiguang Chen, Libo Qin, Jin Zhang et al.
Summary
Existing multi-modal Chain-of-Thought (MCoT) benchmarks, especially ScienceQA, make progress look larger than it is. Recent systems even exceed human accuracy on ScienceQA (T-SciQA reports 96.2% versus 88.4% for humans). The authors trace this to three weaknesses. Many questions can be answered without the image. Visual reasoning usually takes only one step. Commonsense and mathematics are missing entirely.
To fix this, they built M$^3$CoT starting from ScienceQA:
- Automatic filtering and expert annotation removed text-solvable and single-step samples, keeping only items whose reasoning crosses modalities at least twice.
- LLM-guided augmentation added mathematics items (from MATH, with generated options and rendered images) and commonsense items (from Sherlock visual clues).
- Quality control included an onboarding test and human rechecking.
The authors then tested a wide range of MCoT methods, spanning prompting, tool usage, in-context learning and fine-tuning, across numerous Vision Large Language Models (VLLMs). Even the strongest models remain far below human performance, so M$^3$CoT offers a more realistic and harder testbed for multi-step multimodal reasoning.
Key points
- Size and scope: M$^3$CoT contains 11,459 questions and 11,293 images. It covers science, commonsense and mathematics, and every sample requires multi-step multimodal reasoning.
- Annotation effort:
- Annotators had to score at least 80% on a 100-sample onboarding test.
- Annotation took about 450 human-hours, plus 60 hours of rechecking.
- Six experts and three students did the work.
- Step segmentation follows ROSCOE.
- Main findings:
- CoT abilities emerge only in VLLMs with 13B or more parameters.
- Fine-tuning helps most, while tool usage and prompting strategies largely fail.
- Human gap: GPT4V with CoT scores about 62.6% overall, versus roughly 91.6% for humans.
- Availability and limitations: The data is English-only and released at github.com/LightChen233/M3CoT.
