MiMo: Unlocking the Reasoning Potential of Language Model — From Pretraining to Posttraining

Paper · 2025 · LLM-Core Xiaomi, Bingquan Xia, Bowen Shen et al.

Summary

The paper asks whether a small model of about 7B parameters can reach strong reasoning in both math and code, a result previously achieved mostly by 32B-scale bases. The authors argue that reasoning ability must be built in during pre-training, not only added afterwards. MiMo-7B-Base was trained from scratch on roughly 25 trillion tokens. Its data pipeline used improved HTML and PDF extraction that keeps formulas and code, LLM-based quality tagging, and synthetic reasoning traces, combined in a three-stage mixture. Multi-Token Prediction served as an auxiliary objective. For post-training, the team assembled 130K rule-verifiable math and coding problems for RL. They added a code reward that grades test cases by difficulty, which gives denser feedback, and resampled easy data to keep training stable. A custom rollout engine sped up the RL loop. The final MiMo-7B-RL outperforms OpenAI o1-mini on AIME 2025 and LiveCodeBench. This matters because it shows that careful data and RL design can let compact, openly released models compete with much larger systems.

Key points

  • Pre-training mixture: Stage 2 raises the share of math and code data to about 70%. Stage 3 adds about 10% synthetic responses and extends the context from 8,192 to 32,768 tokens. MiMo-7B-Base scores 75.2 on BBH.
  • RL results: MiMo-7B-RL reaches 55.4 on AIME 2025, 4.7 points above o1-mini, and 57.8 on LiveCodeBench v5. MiMo-7B-RL-Zero, trained directly from the base model, beats RL runs on a 32B base.
  • Infrastructure: The Seamless Rollout Engine keeps rollouts running without pause, computes rewards asynchronously, and stops generation early when possible. It makes training 2.29× faster and validation 1.96× faster. MTP support was also added to vLLM.
  • Later update (MiMo-7B-RL-0530):
    • The SFT set was scaled from about 500K to 6M examples.
    • Training switched to on-policy RL with a generation budget raised in steps (32K→38K→48K).
    • The model reaches 80.1 on AIME 24 and 70.2 on AIME 25, roughly matching DeepSeek-R1 in math.
  • Lessons from the discussion:
    • A light format-only SFT hurt the final results.
    • Math rewards were easier to exploit than test-based code rewards.
    • A language-mixing penalty proved hard to design and invited new reward hacking.
    • All checkpoints (base, SFT, RL-Zero, RL) are released on GitHub (xiaomimimo/MiMo).
