Towards System 2 Reasoning in LLMs: Learning How to Think With Meta Chain-of-Thought

Paper · 2025 · Violet Xiang, Charlie Snell, Kanishk Gandhi et al.

Summary

Large language models handle routine math well but still fail on harder problems. The authors argue that ordinary Chain-of-Thought (CoT) is part of the cause. Written solutions in training data show only the polished final derivation. They omit the hidden, non-linear work of trying options, checking them and abandoning dead ends. The paper proposes Meta Chain-of-Thought (Meta-CoT), which models that latent search-and-verify process explicitly and frames it as System 2 reasoning. It is a position paper and offers a roadmap rather than one benchmark result.

The authors cite behaviour of OpenAI's o1 and DeepSeek-R1 that looks like in-context search. They report small experiments on exploration and backtracking. They also review how Meta-CoT training data could come from process supervision and from search algorithms such as MCTS and A*. Their proposed pipeline has two steps: instruction tuning on linearized search traces, then RL post-training. The work matters because it gives a structured agenda for reasoning models, but the authors acknowledge the pipeline still needs empirical validation.

Key points

  • Frontier models such as GPT-4o and Claude largely solve Hendrycks MATH Levels 1–3. They still struggle with Levels 4–5, HARP and Omni-MATH.
  • The authors announce the "Big MATH" project, which aims to collect over 1,000,000 high-quality, verifiable math problems.
  • On the First AIMO Prize, a Tool-Integrated Reasoning (TIR) model was trained on 100K problems, a quarter of the data used for a 400K-problem CoT model. TIR still scaled better and reached nearly double the accuracy with 2^0–2^3 samples.
  • A cited "meta" value function considers earlier solution attempts, unlike a standard single-turn PRM. It showed better search scaling.
  • Open questions include:
    • scaling laws for reasoning and search;
    • the verifier gap and CoT faithfulness;
    • whether meta-RL can discover new search algorithms.
