AgentGym: Evolving Large Language Model-based Agents across Diverse Environments

Paper · 2024 · Zhiheng Xi, Yiwen Ding, Wenxiang Chen et al.

Summary

Today's LLM-based agents are trained in one of two ways. Some copy expert demonstrations, which is costly and limits exploration. Others improve through feedback inside a single environment, which yields narrow specialists. This paper asks whether one agent can first learn by imitation and then keep improving across many environments at once.

The authors release AgentGym, which has four parts:

  • Platform: 14 environments and 89 task types covering web, embodied, game, tool-use and SQL settings. Each runs as an HTTP service with a shared ReAct-style interface.
  • AgentEval: a benchmark suite.
  • AgentTraj and AgentTraj-L: two trajectory sets in a uniform format.

They also propose AgentEvol. A base agent is first trained with behavioral cloning on AgentTraj. It then repeatedly explores new instructions and fine-tunes on its own high-reward trajectories.

The evolved agents beat both the BC baseline and the larger-data BC model in most cases, and reach performance comparable to SOTA models. The open release gives the community a common testbed for studying generalist agents that improve themselves.

Key points

  • Environments: WebArena, WebShop, MAZE, Wordle, ALFWorld, SciWorld, BabyAI, TextCraft, five Tool-* environments (Weather, Movie, Academia, Sheet, TODOList) and BIRD.
  • Instruction expansion: instructions were enlarged through crowdsourcing, self-instruct and instruction evolution. AgentTraj-L extends AgentTraj and marks the upper bound reachable by BC alone.
  • Main gains: on WebShop, ALFWorld, BabyAI and TextCraft, AgentEvol raises the BC base agent from 66.5/77.5/69.3/44.0 to 77.0/88.0/82.9/65.0.
  • Ablations:
    • Keeping exploration within the BC-phase instructions gives much smaller gains (70.0/80.5/70.7/49.0).
    • Using DPO on pairs of successful and failed trajectories also trails AgentEvol (75.0/86.5/78.3/58.0).
    • One sample per instruction (K = 1) was chosen for efficiency.
  • Other backbones: the method transfers to Llama2-Chat-13B, where it beats BC large on all four tasks (e.g., TextCraft 71.0 vs 61.0). It also transfers to DeepSeek-Coder-1.3B, where results are mostly comparable to or above BC large.
