BOLAA: Benchmarking and Orchestrating LLM-augmented Autonomous Agents
Paper · 2023 · Zhiwei Liu, Weiran Yao, Jianguo Zhang et al.
Summary
Agents built around large language models, which the authors call LLM-augmented Autonomous Agents (LAAs), choose actions and react to what the environment returns. Two design questions had received little systematic study: which agent architecture to use, and which LLM backbone to pair with it. This Salesforce Research paper addresses both. The authors assemble agent benchmarks from existing environments, with tasks graded by difficulty. They then test several agent designs on many LLMs. The designs differ in how they use zero-shot versus few-shot prompting, explicit "thinking" steps, and planning. The authors also introduce BOLAA, a multi-agent scheme. In BOLAA, a controller sends work to specialised "labor" agents, each of which handles a single kind of action, and manages communication between them. Experiments cover the WebShop web-navigation environment, which tests decision-making, and a multi-step knowledge-reasoning environment. On WebShop, BOLAA beat every other architecture tested. The authors conclude that combining specialised agents can matter as much as training a larger, more general LLM. The findings give practical guidance for matching agent designs to LLMs.
Key points
- Six LAA architectures are compared: five solo agents and the multi-agent BOLAA. The solo agents include Zeroshot LAA (ZS-LAA), ZeroshotThink LAA (ZST-LAA, which adds self-thinking) and ReAct LAA (which adds few-shot examples).
- In BOLAA, a controller selects among labor agents and coordinates them. For example, a click agent and a search agent could share a web navigation task.
- The evaluation reports both final sparse rewards and intermediate recall. Task complexity levels allow performance to be analysed by difficulty.
- BOLAA achieved the best results on WebShop among all architectures evaluated.
- The implementation is public at github.com/salesforce/BOLAA (arXiv:2308.05960, 2023).
