SceneAlign: Aligning Multimodal Reasoning to Scene Graphs in Complex Visual Scenes

Paper · 2026 · Chuhan Wang, Xintong Li, Jennifer Yuntong Zhang et al.

Summary

Multimodal LLMs often produce rationales that sound convincing but are not tied to what the image actually shows. Common failures include invented objects, reversed subject–object relations, skipped steps, and irrelevant elaboration. Earlier preference-tuning methods build negative examples by editing tokens or by conditioning on wrong answers. Such negatives can be spotted from language cues alone, so the model never has to look at the image.

SceneAlign generates negatives from scene graphs instead. GPT-4o first parses each image–question pair into a scene graph, and the model writes a chain of thought grounded in that graph. The authors then isolate the subgraph the rationale actually uses and apply four edits: swap, replace, shorten and overthink. New rationales are produced from the edited graphs. These candidates are filtered by Jaccard overlap with the original graph and sampled for diversity. The resulting positive–negative pairs are used to train the model with DPO.

Across seven visual reasoning benchmarks, both accuracy and step-level grounding improve. This suggests that structured visual supervision makes more realistic hard negatives than text-only edits do.

Key points

  • Four perturbation operators, each targeting a typical grounding error:

    • swap → role mis-binding (subject and object exchanged)
    • replace → hallucination, using unused elements from the same graph
    • shorten → missing inference steps
    • overthink → over-specification

Ablations show that removing any single operator reduces performance.

  • Filtering and sampling settings: Jaccard bounds of γℓ = 0.3 and γu = 0.7 work best, with performance following an inverted-U curve as the bounds change. Three negatives per instance gave the best trade-off between cost and effectiveness.

  • Accuracy gains: improvements of roughly 3–5% on reasoning-intensive tasks, with benchmarks including MMMU-Reasoning and SEED-Bench.

  • Faithfulness evaluation: on A-OKVQA, GPT-4o rated each reasoning step of Qwen2.5-VL-3B-Instruct on a 0–5 scale.

    ModelGrounding score
    Pretrained1.997
    SFT2.215
    SceneAlign2.832
  • Limitations: the method covers single images only, and it relies on GPT-based models both to generate rationales and to evaluate them.
