Reinforcement Learning for Self-Improving Agent with Skill Library

Paper · 2026 · Jiongxiao Wang, Qiaojing Yan, Yawei Wang et al.

Summary

Agents built on LLMs and trained with RL often stay tied to their training scenarios. They struggle to turn experience gathered after deployment into better performance on later tasks. Skill libraries, where agents store reusable routines, can help, but current versions rely on hand-written prompts and so depend on how well the base model follows instructions. The authors propose SAGE (Skill Augmented GRPO for self-Evolution). It trains a CodeAct-style, API-calling agent to write skills as executable functions while solving a task and to reuse them later. SAGE extends GRPO in two ways. Sequential Rollout runs the agent through a chain of related tasks, so functions written earlier stay available further along the chain. A Skill-integrated Reward adds a bonus for creating and applying useful skills on top of the outcome reward. Qwen2.5-32B-Instruct is first supervised-fine-tuned on expert trajectories from stronger LLMs and then trained with SAGE on AppWorld. Compared with plain GRPO, it completes more scenarios with fewer steps and far fewer tokens. This shows RL can make skill reuse both more accurate and cheaper.

Key points

  • On AppWorld Test Normal, SAGE reaches 72.0% TGC and 60.7% SGC with 12.1 average steps and 1,475 tokens. The GRPO baseline gets 69.2% TGC and 51.8% SGC with 16.4 steps and 3,613 tokens, so SAGE gains about 8.9 SGC points while using 26% fewer steps and 59% fewer tokens.
  • Against prompting-based skill library approaches, SAGE roughly triples SGC (60.7% vs. 19.6%), halves generated tokens, and more than doubles the success rate when applying learned skills (0.72 vs. 0.31).
  • Task chains can be built without scenario labels by similarity search with all-MiniLM-L6-v2 (SentenceTransformers), with comparable results (72.8% TGC, 62.5% SGC).
  • In ablations, the Skill-integrated Reward beats outcome-based and chain-based rewards. SFT initialization on expert data clearly outperforms starting from the base model, self-distillation, or an RL warm-up.
  • Evaluation covers only AppWorld. Code is released at github.com/amazon-science/SAGE.
