DeepPrune: Parallel Scaling without Inter-trace Redundancy
Paper · 2026 · Shangqing Tu, Yaxuan Li, Yushi Bai et al.
Summary
Parallel scaling has an LLM generate many Chain-of-Thought traces for one problem and aggregate them. It improves reasoning accuracy but consumes enormous token budgets. The authors show that most of this spending is redundant. Across trace pairs from four reasoning models, more than 80% of pairs reach the same final answer. Generic similarity signals detect this poorly early on: SentenceBERT is close to chance, and a zero-shot LLM judge is only moderately better.
Their framework, DeepPrune, trains a judge LLM to predict from truncated, unfinished traces whether two traces will reach an identical answer. Focal loss and oversampling handle the class imbalance. During generation, an online greedy clustering step uses the judge to halt traces that duplicate an existing cluster. Only diverse traces run to completion, and majority voting over them gives the final answer.
On AIME 2024, AIME 2025 and GPQA, with reasoning models unseen during training, DeepPrune cuts tokens by roughly two-thirds to nearly nine-tenths compared with 512-sample consensus voting. The accuracy cost is small, so costly test-time reasoning becomes much cheaper.
Key points
- Redundancy analysis: 16 traces per problem were generated by DeepSeek-R1-Distill-Llama-8B, Qwen3-4B-Thinking-2507, GLM-4.5-Air and QwQ-32B. Pairing them gave about 12,000 trace pairs per model, and over 80% of pairs share an answer. Baselines for predicting this early scored AUROC 0.58 (SentenceBERT, first 500 tokens) and 0.66 (Qwen3-4B-Instruct).
- Judge training: the judge was trained only on DeepSeek-R1-Distill-Llama-8B traces from AIME 2022, AIME 2023 and MATH 500. With first-800-token prefixes plus oversampling, it achieved a mean AUROC of 0.7072, with a TPR of 0.5063, when evaluated on three unseen models.
- Online results: with DeepSeek-8B, Qwen3-32B and GPT-OSS-20B, token use dropped by 65.73%–88.50% versus cons@512. Accuracy stayed within roughly 3 percentage points (at most 3.4), and DeepPrune outperformed DeepConf.
- Ablations: truncating by reasoning words worked better than raw token prefixes, with intermediate lengths best (e.g., 500 tokens or 25 reasoning words). A redundancy threshold of τ = 0.5 gave the best trade-off between efficiency and answer diversity.
- Limitations: the judge is trained on a single model family and adds its own inference cost. Greedy clustering can occasionally discard useful diverse traces.
