Towards Reasoning Ability of Small Language Models
Paper · 2025 · Gaurav Srivastava, Shuxiang Cao and Xuan Wang
Summary
The paper questions the long-held view that reasoning appears only in very large models (around 100B parameters). It asks how well small language models (SLMs) reason, defined as models up to roughly 30B parameters or compressed equivalents. It also asks whether compression keeps or damages that ability. The authors present THINKSLM, a benchmark and public leaderboard.
They first compared parsing-based scoring, lm-eval-harness and several LLM judges against human ratings. GPT-4-Turbo and GPT-4o matched human verdicts best, so they served as the main graders. The team then tested 72 SLMs from six families, including trained-from-scratch, quantized, pruned and distilled variants. Tasks covered math, science, commonsense, synthetic sorting and robustness tests, and every run was repeated three times.
Training recipe and data quality turned out to matter more than raw size. Quantization largely kept reasoning intact, while pruning badly degraded it. Larger models were more robust, yet some small ones, notably Qwen2.5, came close to proprietary LLMs. This gives practical guidance for cheap, private local deployment.
Key points
- Scale: 72 models from six families (e.g., Llama, Qwen) were evaluated on 17 benchmarks:
- GSM8K, MATH, MathQA, ARC-E, ARC-C, CommonsenseQA, OpenBookQA and HellaSwag;
- six sorting tasks with 8, 16 or 32 numbers, either positive-only or mixed-sign;
- three robustness sets: MR-Ben, MR-GSM8K and GSM-Plus.
- Grading: GPT-4-Turbo and GPT-4o showed about 98% agreement with human judgments, beating rule-based parsing and lm-eval-harness.
- Compression: A 4-bit Qwen-14B outperformed full-precision Qwen-7B on every task at the same memory cost. Pruned models often produced incoherent or truncated answers.
- Qwen2.5 family:
- Qwen2.5-32B rivaled GPT-4-Turbo on intermediate-reasoning evaluation.
- The authors credit its 18T-token pretraining plus SFT and multi-stage RL.
- Prompting: On GSM8K, five prompting styles were compared: Direct I/O, CoT, 5-shot, CoT 5-shot and 8-shot.
- Self-reflection prompts added about 14% for instruction-tuned Qwen-3B but only about 4% for its RL-aligned version.
