Scaling Test-Time Compute Without Verification or RL is Suboptimal
Paper · 2025 · Amrith Setlur, Nived Rajaraman, Sergey Levine et al.
Summary
The paper asks how LLMs should be fine-tuned to make good use of extra test-time compute, measured as output token budget H. It compares two families of methods. Verifier-free (VF) methods imitate expert or distilled reasoning traces through supervised fine-tuning, as in S1 or OpenThinker. Verifier-based (VB) methods use a correctness signal, such as 0/1 outcome rewards or trained verifiers, to guide RL or search.
The authors formalize two properties of the base model. Heterogeneity means that correct solutions vary widely, for example in length. Anti-concentration means the model has a fair chance of sampling traces somewhat better than its average. Under these conditions, they prove that VB methods beat any VF method at a fixed budget, and that the advantage widens as H and training data grow together.
Experiments with 3B/8B Llama models, the 32B S1 model, a didactic setup and the MATH/AIME benchmarks support the theory. The practical takeaway is that rewards or verifiers are needed if test-time scaling is to keep improving.
Key points
- VF lower bound: the suboptimality of any VF method grows with the base model's heterogeneity, reaching Ω(H/√n) in the worst case.
- VB upper bound: a simple RL method with outcome rewards or a trained verifier achieves 𝒪(H/n). The resulting gap scales roughly as √H when n = Ω(H).
- Empirical comparison: best-of-N search with a verifier outperforms the distillation-trained S1 model across compute budgets. In controlled Llama experiments, VF degrades as base-model heterogeneity increases.
- Anti-concentration in practice: on MATH, Llama-3.1-8B is roughly 0.25-anti-concentrated (0.26 on easy problems, 0.27 on hard ones, with κ = 0.5).
- Caveat: VF can outperform VB when heterogeneity is low. The authors argue this is rare for modern LLMs.
