WildReward: Learning Reward Models from In-the-Wild Human Interactions
Paper · 2026 · Hao Peng, Yunjia Qi, Xiaozhi Wang et al.
Summary
Reward models for LLM training usually depend on large sets of human-annotated preference pairs, which are expensive to collect. This ACL 2026 paper asks whether such models can instead be learned from feedback that users leave naturally while chatting with deployed LLMs. Analysing WildChat logs, the authors find two obstacles. Most follow-up messages carry no explicit judgment, and some negative reactions are unfair, such as complaints about legitimate safety refusals. To address this, they build an automated pipeline. First, gpt-oss-120b sorts follow-up turns into five satisfaction levels and falls back to a neutral label when evidence is weak. Two refinement steps then recover hidden positive signals and fix unjustified negative labels. After neutral items are removed, the result is WildFB, a dataset of roughly 186k point-wise examples. WildReward is trained on these labels with ordinal regression rather than pairwise comparisons. It matches or beats conventional reward models on standard benchmarks and is better calibrated. It also gets stronger as more distinct users contribute data, and it improves policies trained with online DPO. The work suggests that real usage logs can stand in for dedicated preference annotation.
Key points
- In a 10,000-sample WildChat analysis, about 82% of follow-up queries were neutral, 17% negative, and only 1% explicitly positive.
- The five feedback levels, from most negative to most positive, are: outright rejection, correction of mistakes, ambiguous or neutral responses, positive engagement, and explicit satisfaction.
- Implicit feedback mining relabels neutral queries as positive when they closely match a positive-feedback query within two turns. Similarity uses all-MiniLM-L6-v2 embeddings with a threshold above 0.6. This step added about 12,310 positives, a 29% increase.
- Refusal validation corrected about 572 wrongly negative labels on justified safety refusals, which helped on safety subsets of the benchmarks.
- Evaluation covered RewardBench, RM-Bench, PPE, and JudgeBench, plus a new implicit feedback prediction task scored by ROC-AUC. Online DPO gains appeared in math reasoning, instruction following, and creative writing.
- Limitations: only English and Chinese conversations were used. WildFB is released under Apache 2.0.
