PiSSA: Principal Singular Values and Singular Vectors Adaptation of Large Language Models

Paper · 2024 · Fanxu Meng, Zhaohui Wang and Muhan Zhang

Summary

LoRA is a widely used way to fine-tune large language models cheaply. It starts its two low-rank adapter matrices from random noise and zeros. The authors argue that this start gives weak, uninformative gradients early in training, so convergence is slow and may end in a worse solution.

PiSSA keeps LoRA's architecture but changes the initialization. It runs a singular value decomposition on each pretrained weight matrix in the attention and MLP layers. The top-r singular values and vectors initialize the trainable adapter, and the rest becomes a frozen residual matrix. Training therefore adjusts the most influential directions of the original weights, not an empty update.

A quantized variant, QPiSSA, compresses only the residual to 4-bit NF4. This yields smaller quantization error than QLoRA or LoftQ. Across many models, tasks and ranks, PiSSA beat LoRA under matched settings. Because a fast SVD makes setup take seconds, it can be dropped into existing LoRA pipelines with almost no extra cost.

Key points

  • Evaluated on 11 models (184M to 70B parameters), including LLaMA 2/3, Mistral-7B, Gemma-7B, Qwen1.5-7B, Yi-1.5-34B, DeepSeek-MoE-16B and Mixtral-8x7B, covering 5 NLG and 8 NLU tasks.
  • GSM8K results: Gemma-7B scored 77.7% with PiSSA versus 74.53% with LoRA. LLaMA-3-70B reached 86.05% with QPiSSA versus 81.73% with QLoRA.
  • QPiSSA cuts quantization error by roughly 20% relative to QLoRA, with the largest advantage over LoftQ at low ranks.
  • Training data included MetaMathQA (100K/395K) and CodeFeedback-100K, with evaluation on GSM8K, MATH and HumanEval. At higher ranks, PiSSA matched or exceeded full fine-tuning.
  • The paper was published at NeurIPS 2024, and code is available at github.com/GraphPKU/PiSSA. Open questions the authors list include vision/convolutional layers, combining PiSSA with adaptive-rank methods, and stronger theoretical explanations.
