Exploring Versatile Generative Language Model Via Parameter-Efficient Transfer Learning
Paper · 2020 · Zhaojiang Lin, Andrea Madotto and Pascale Fung
Summary
Fine-tuning a large pre-trained generator separately for every downstream task produces one full-size model per task, which is costly on memory-limited devices such as phones. The authors propose the Versatile Language Model (VLM), which uses one shared GPT-2-small (124M) backbone for five generation tasks. Each task gets its own lightweight components: low-rank residual adapter layers (layer normalization followed by a bottleneck autoencoder with a residual connection) and task-specific segment embeddings. For tasks far from GPT-2's pre-training distribution, they apply sentence-level knowledge distillation, training the adapters on outputs from a fully fine-tuned teacher. They compare a frozen backbone, which supports adding tasks one after another (continual learning), with joint multi-task training that also updates GPT-2. With only about 2–3% extra parameters per task, VLM matches or slightly exceeds full fine-tuning on average. This makes a single deployable model for many generation tasks practical.
Key points
- Five tasks and datasets are covered: Persona-Chat (dialogue), IWSLT German-English (NMT), CNN/Daily-Mail (summarization), CoQA (conversational QA) and E2E NLG-challenge (task-oriented NLG).
- DLG and SUM use an adapter bottleneck size of 100, NMT and QA use 300, and NLG uses just 10. Together they add 13% parameters, giving 1.13× total storage versus 5× for five separately fine-tuned GPT-2 models.
- On the average score, the frozen-backbone VLM reaches 57.97, compared with 57.77 for full fine-tuning. Fine-tuning only the LM head performs worse while storing more parameters.
- Distillation helps narrow the gap in NMT (VLM 24.19 vs. 25.45 BLEU) and SUM (18.0 vs. 18.1 ROUGE-2). It has no effect on NLG. Removing the task embeddings causes a sharp drop, with NMT falling below 1 BLEU.
- Multi-task training with a trainable backbone raises CoQA F1 by about 3 points (69.3 vs. 66.2). The frozen backbone, however, keeps GPT-2 unchanged and can be extended to new tasks. The code is available at github.com/zlinao/VGLM.
