Parameter-Efficient Fine-Tuning Design Spaces

Paper · 2023 · Jiaao Chen, Aston Zhang, Xingjian Shi et al.

Summary

Existing parameter-efficient fine-tuning (PEFT) techniques such as Adapter, Prefix tuning, BitFit and LoRA were each designed by hand and usually applied identically to every layer. The authors ask whether general design regularities exist across these techniques. Rather than proposing one more method, they define PEFT design spaces with four dimensions: how consecutive layers are grouped, how a fixed trainable-parameter budget is spread across layers, which groups are tuned, and which strategy each group receives. Starting from an unconstrained space, they sample random models, compare their quality, and greedily fix one dimension at a time. They mainly use T5 on GLUE classification. Four patterns emerge: spindle-shaped layer grouping, uniform parameter allocation, tuning every group, and mixing strategies across groups. The resulting S4-model (T5-base) and S4-3b-model (T5-3b) use only 0.5% trainable parameters. They beat the single-strategy baselines and can even exceed full fine-tuning. The same patterns also carry over unchanged to RoBERTa, BART and generation tasks, which suggests that design-space search yields reusable PEFT recipes.

Key points

  • The design space is made up of four parts: how layers are grouped, how the trainable-parameter budget is distributed, which groups get tuned, and how strategies are assigned. Strategies are chosen among Adapter, Prefix, BitFit and LoRA.
  • The budget is set to 0.5% of backbone parameters (0.1% for BitFit), following He et al. [2022]. Training used 8 A100 GPUs.
  • On GLUE with RoBERTa-base, the S4-model averages 87.1, compared with 86.5 for full fine-tuning and 86.4 for LoRA. With RoBERTa-large, the S4-3b-model reaches 89.3, compared with 88.9 for full fine-tuning and 88.8 for LoRA.
  • The patterns were transferred without any re-search to BART on XSUM summarization and en-ro translation. With BART-large, the method scores 37.2 BLEU on en-ro, ahead of 36.4 for the parallel adapter (PA) and 35.8 for LoRA.
  • Code is published at github.com/amazon-science/peft-design-spaces.
