MathTutorBench: A Benchmark for Measuring Open-ended Pedagogical Capabilities of LLM Tutors
Paper · 2025 · Jakub Macina, Nico Daheim, Ido Hakimi et al.
Summary
Judging how well an LLM teaches, rather than how well it solves problems, has relied on two weak options. Word-overlap metrics miss what good tutoring involves. Human annotation is costly and cannot be rerun on future models. The authors address this with MathTutorBench, an open benchmark for dialog-based math tutoring. It groups tasks into three skill areas drawn from learning sciences: math expertise, student understanding, and pedagogical response generation.
Expertise and understanding use standard metrics. For open-ended teacher turns, the authors train a lightweight reward model on pedagogical preference data. It scores how well a reply scaffolds learning with hints and questions instead of revealing the solution. Model outputs are then compared against real teacher replies as a win rate.
Testing many closed- and open-weight LLMs and specialized tutors revealed a trade-off. Strong problem solvers tend to teach poorly, while tutoring-specialized models give up some solving accuracy. Tutoring quality also drops as dialogs grow longer. The benchmark offers a cheap, repeatable proxy for screening models before human studies.
Key points
- Task datasets:
- GSM8k (1,319 items) for problem solving and Socratic question generation.
- StepVerify (2,004 items) for checking solution correctness and locating mistakes, plus 1,002 items for mistake correction.
- MathDialBridge (1,150 dialogs) and a harder MathDialBridge[hard] split (327 dialogs, about 5.78 turns on average) for scaffolding and pedagogical instruction following.
- Reward model accuracy: The final reward model separates expert from novice teacher responses with 0.84 accuracy. It beats LLM-as-a-judge setups and general RewardBench reward models.
- Training data ablation:
- Synthetic inpainted GSM8k data added little.
- Human-annotated preference pairs from Maurya et al. raised accuracy to 0.8.
- Adding filtered MathDial training conversations produced the best result.
- Main findings: Subject expertise and pedagogy form a trade-off that depends on how specialized a model is for tutoring. General models lose quality faster as conversations extend, since basic questioning approaches stop working over more turns.
- Scope and availability: The benchmark covers only high-school multi-step math, with dialogs of at most 10 turns, and includes no safety evaluation. Code, data and leaderboard are released under CC-BY-4.0 (github.com/eth-lre/mathtutorbench).
