Opportunities and Challenges in Neural Dialog Tutoring

Paper · 2023 · Jakub Macina, Nico Daheim, Lingzhi Wang et al.

Summary

Neural conversational systems built on large language models have advanced quickly, but dialog tutoring has seen little benefit from this progress. Most tutoring systems are still rule-based or depend on materials hand-authored by teachers. The authors define dialog tutoring as a task: a teacher response is generated from the dialog history, the teacher's dialog acts (pedagogical strategy) and textual grounding. They then benchmark generative and retrieval-based models on two openly available language-learning corpora, CIMA and TSCC. One of the generative models is a CTRL variant with control tokens meant to improve faithfulness.

Evaluation combines three parts:

  • automatic metrics,
  • human quality ratings,
  • a user study with expert annotators in a learning interface.

Pretrained models outperform simpler baselines on automatic scores and cope reasonably well with narrow tasks that involve few concepts and strategies. They break down in open-ended tutoring, where they fail to reason about student answers and misconceptions. The study also exposes three wider gaps in the field: datasets are scarce and small, their pedagogical quality is weak, and current metrics do not capture tutoring quality. The authors use these findings to set an agenda for future research.

Key points

  • Only three open tutoring dialog datasets exist: CIMA (crowdsourced role-play on translating English prepositional phrases into Italian), TSCC (real one-on-one English tutoring in a chatroom) and TalkMoves (multi-party K-12 math classroom transcripts). Experiments use CIMA and TSCC only.

  • The two corpora differ sharply in size and complexity:

CorpusTraining samplesDialog actsAverage previous turns per teacher response
    CIMA2,7155~4.6
    TSCC5,84523~68.3
  • In the user study, expert annotators found substantial model reasoning errors in 45% of conversations.

  • On equitable tutoring (learning opportunities and engagement for students), both model outputs and the ground-truth responses scored low. This suggests that crowdsourcing with untrained annotators, as in CIMA, produces weak pedagogy.

  • BLEU and BertScore correlated poorly with human judgements. The authors propose several directions:

    • task-success-oriented metrics,
    • knowledge tracing,
    • taxonomies grounded in learning sciences,
    • constrained decoding,
    • few-shot prompting.
