LED-Merging: Mitigating Safety-Utility Conflicts in Model Merging with Location-Election-Disjoint

Paper · 2025 · Qianli Ma, Dongrui Liu, Qian Chen et al.

Summary

Combining several fine-tuned LLMs into one through training-free model merging tends to weaken safety. The merged model gains skills such as math or coding but becomes more willing to produce harmful output. The authors trace this to two causes. First, existing methods pick neurons by parameter magnitude, which misidentifies the safety-relevant ones. Second, updates from different tasks collide on shared neurons.

Their method, LED-Merging, works in three steps:

  • Location: it scores neuron importance with gradient-based attribution (SNIP) in both the base and the fine-tuned models.
  • Election: it selects critical neurons by combining the importance signals from both models.
  • Disjoint: it uses set-difference operations so that each task's updates touch separate parameters.

The method was tested on homologous merges of Llama-3-8B, Mistral-7B and Llama2-13B models. Safety was measured with HarmBench and SORRY-Bench, and utility with GSM8K, MATH, MBPP and HumanEvalPack. LED-Merging cut harmful responses substantially while keeping about 95% of utility. This matters because it improves safety without extra alignment training or labeled data.

Key points

  • On HarmBench, safety improved by 31.4% for Llama-3-8B-Instruct and by 70.8% for WizardLM-13B, with GSM8K accuracy reaching 52.39%.
  • Ablation results:
    • The full pipeline gives 16.00% attack success rate (ASR) on HarmBench and 50.34% on GSM8K.
    • Without the disjoint step, ASR rises to 63.00%, although GSM8K improves to 72.93%.
  • Among location methods, SNIP gave the best balance; random selection and Wanda hurt instruction following and math.
  • Electing neurons from both the base and fine-tuned models beat using either model alone.
  • Jaccard analysis of the top 20% safety and utility neurons in Llama3-8B shows heavy overlap, especially in attention layers.
  • The scope is limited to merging models from the same base; heterogeneous and multilingual merging are left for future work.
