Aligner: Efficient Alignment by Learning to Correct
Paper · 2024 · Jiaming Ji, Boyuan Chen, Hantao Lou et al.
Summary
Standard alignment pipelines such as SFT and RLHF are costly. They need several large models during training and are slow to re-run when requirements shift. They also require access to model weights, which API-only systems do not provide. The authors propose Aligner, a small conditional seq2seq model that sits after any upstream LLM. It receives the user query and the upstream answer, then rewrites that answer into a better-aligned version. Training uses a preference-style corpus of query, original answer and corrected answer triples. The model learns the "correctional residual" between weaker and better responses, an idea borrowed from ResNet-style residual learning. A warm-up stage first teaches the model to copy answers unchanged before it learns to correct them. One trained Aligner improved helpfulness, harmlessness and honesty scores across 11 open-source and API-based LLMs, including GPT-4 and Claude 2, without touching their parameters. This matters because alignment becomes a cheap, reusable add-on whose cost depends on the Aligner's size, not the upstream model's. The main trade-off is extra inference cost.
Key points
- Aligner-7B raised helpfulness by 68.9% and harmlessness by 23.8% on average across the 11 upstream models. Hallucination also decreased. Benchmarks included E-Dialogue, DialogSum, BeaverTails, HarmfulQA and TruthfulQA.
- On GPT-4, Aligner-7B increased harmlessness by 26.9%. The helpfulness gain is about 17%, reported as 17.5% in one place and 17.0% in another.
- Stacking Aligner-2B on GPT-4 Turbo lifted its Alpaca-Eval LC Win Rate from 55.0% to 58.3%. This exceeds the 57.5% community-reported figure for GPT-4 Omni.
- For aligning a 70B model, Aligner-7B needs 11.25× fewer training parameters than DPO and 22.5× fewer than RLHF. Implementing it requires only a one-line change to SFT code.
- Answers corrected by Aligner can serve as synthetic preference data for multi-round fine-tuning of the upstream model. The Aligner dataset is released under CC BY-NC 4.0, and the paper appeared at NeurIPS 2024.
