Reinforcing Agentic Search Via Reward Density Optimization

Paper · 2026 · Kun Luo, Hongjin Qian, Zheng Liu et al.

Summary

Training search agents with reinforcement learning from verifiable rewards (RLVR) runs into a sparsity problem. On long, multi-turn deep-search tasks, most rollouts end with a wrong answer, so many training samples give no useful gradient. The authors frame this as Reward Density Optimization, which means maximizing expected reward relative to exploration cost, approximated by trajectory length. They propose InfoFlow, which has three parts:

  • Sub-goal scaffolding: gives weighted partial credit for reaching key intermediate entities.
  • Pathfinding hints: inserts guiding search queries when a rollout stalls.
  • Dual-agent design: a researcher agent plans and searches, while a refiner agent compresses retrieved content into short structured notes.

Supervision comes from LLM annotation (Gemini 2.5 or Qwen3-8B) of the InfoSeek dataset. Evaluated on general QA benchmarks, InfoSeek-Eval and BrowseComp-Plus, InfoFlow-7B beats strong baselines. It lets a lightweight model approach the performance of much larger or proprietary systems. This suggests that denser process-level feedback makes RL for deep search practical at small scale.

Key points

  • Training data: 18,000 InfoSeek instances, enriched with weighted sub-goals and hint queries. Annotation with open-source Qwen3-8B performs nearly as well as with Gemini 2.5, and the method also transfers to HotpotQA.
  • Dual-agent refinement: yields up to 59.5% higher initial rewards, 16.4% less inference time and 44.8% shorter trajectories.
  • Full-model results: InfoFlow-7B scores 46.2 average on seven QA tasks, 23.2 on BrowseComp-Plus and 47.8 on InfoSeek-Eval.
  • Ablations: removing dual-agent RFT hurts most (BrowseComp-Plus falls to 10.2). Removing sub-goal rewards gives 21.4 and removing hints gives 20.1 on BrowseComp-Plus.
  • Remaining failures: retrieval bottlenecks account for 48.2%, incomplete reasoning or verification for 33.7%, and early planning errors for 18.1%. Experiments are limited to models up to 7B and to text-only search.
