Search and Refine During Think: Facilitating Knowledge Refinement for Improved Retrieval-Augmented Reasoning
Paper · 2025 · Yaorui Shi, Sihang Li, Chang Wu et al.
Summary
Retrieval-augmented LLMs trained with reinforcement learning tend to reason over whole retrieved documents, which are often noisy. They also typically get feedback only on whether the final answer is correct. The authors propose AutoRefine, an RL post-training framework that inserts an explicit <refine> stage after every <search> call. In this stage the model condenses the returned documents into the facts it actually needs, notes what is still missing, and plans its next query. Training uses GRPO with two signals: a reward for answer correctness and a retrieval-specific reward that scores the content of the refine blocks. Retrieved document tokens are excluded from the loss. Evaluated on seven single-hop and multi-hop QA benchmarks with Qwen2.5 base models, AutoRefine beats prior RL-based search agents such as Search-R1, with the largest gains on multi-hop questions. The work matters because it shows that teaching a model to filter and organise evidence, rather than just to search, yields more reliable multi-step reasoning without hand-built search trajectories.
Key points
- Benchmarks: NQ, TriviaQA and PopQA (general QA), plus HotpotQA, 2wiki, Musique and Bamboogle (multi-hop). The retriever returns the top 3 documents from a fixed Wikipedia snapshot.
- Overall gains: AutoRefine improves average accuracy by up to 6.9% over leading baselines. With Qwen2.5-3B-Base, average EM rises from 0.312 (Search-R1) to 0.405. With Qwen2.5-7B-Base, it rises from 0.408 to 0.455.
- Effect of the retrieval reward: it encourages more multi-turn searching and raises the refinement success rate by roughly 20%.
- External refiners fall short: adding BART or Qwen2.5-3B-Instruct as a summarizer to Search-R1 gives averages of only 0.301–0.328. These refiners sometimes help single-hop tasks (e.g., PopQA) but hurt multi-hop ones, whereas RL-learned refinement helps across both.
- Limitations: evaluation relies only on EM/F1/CEM, and the corpus is static. The paper was accepted at NeurIPS 2025, and code is available at github.com/syr-cn/AutoRefine.
