MDCure: A Scalable Pipeline for Multi-Document Instruction-Following
Paper · 2025 · Gabrielle Kaili-May Liu, Bowen Shi, Avi Caciularu et al.
Summary
Large language models can now read very long inputs, yet they still handle sets of related documents poorly. Such inputs require linking facts across texts, coping with redundancy and contradictions, and producing a coherent synthesis. Earlier fixes depended on costly continued pre-training. The authors instead propose MDCure, a two-stage pipeline for building synthetic multi-document (MD) post-training data.
- Generation: a generator LLM receives a cluster of related news articles from NewSHead and is prompted with varied zero-shot templates. The templates are designed so that answers must draw on several documents.
- Filtering: a dedicated multi-criteria reward model, MDCureRM, scores each instruction–answer pair. Low-quality, non-factual or single-document samples are then discarded.
The resulting data were used to fine-tune FlanT5, Qwen2-Instruct and LLAMA3.1-Instruct models of up to 70B parameters. On six MD and long-context benchmarks, these models outperformed both the original base models and MD approaches that rely on pre-training, with gains reaching 75.1%. General skills were preserved. The approach offers a cheap route to better MD reasoning, although so far it covers only English.
Key points
- MDCure instruction datasets were built at 12K, 36K and 72K samples, mainly with GPT-3.5-Turbo as generator; open-source LLAMA3.1-70B worked comparably. Code is released at github.com/yale-nlp/MDCure.
- MDCureRM rates samples on six fine-grained criteria. It filters data more cheaply and effectively than using GPT-3.5-Turbo as the judge.
- MDCureRM also served as the reward signal for PPO training of a LLAMA3.1-8B-Instruct generator. Data from this small generator matched or beat GPT-3.5-Turbo data; for example, the fine-tuned LLAMA3.1-8B-Instruct averaged 53.1 vs. 50.3.
- General abilities were checked on GSM8K, MBPP and MMLU via OLMES. Average scores stayed level or rose slightly, e.g. Qwen2-7B-Instruct 0.707 → 0.721 and LLAMA3.1-8B-Instruct 0.729 → 0.746.
- Stated limitations: English only, abstractive tasks only, and possible remaining factuality errors.
