CDLM: Cross-Document Language Modeling

Paper · 2021 · Avi Caciularu, Arman Cohan, Iz Beltagy et al.

Summary

Tasks such as cross-document coreference resolution, document-pair relation classification and multi-hop question answering require a model that links matching information across several texts. Standard masked-LM pretraining, however, handles each document separately. The authors propose CDLM, which continues pretraining Longformer-base on clusters of topically related news articles from Multi-News. Each cluster is concatenated into one long input, with new document-separator tokens marking boundaries. The second idea concerns attention. Longformer normally leaves its global attention weights untrained until finetuning. CDLM instead gives global attention to every masked token during pretraining, so a hidden word can be recovered by consulting the whole document set. During finetuning, global attention is applied selectively. Ablations compare CDLM with plain Longformer and with a variant trained on the same data using only local attention. They show that both ingredients are needed and reinforce each other. CDLM sets new state-of-the-art results on several multi-text benchmarks despite a small pretraining corpus and a base-size model. It works as a general encoder, so multi-document tasks no longer need specialised architectures.

Key points

  • Pretraining data: Multi-News, with 44,972 training clusters of 2–10 source documents each. Only clusters with at least 3 documents were used. Randomly sampled documents were packed up to Longformer's 4,096-token limit.
  • Training setup: 15% of tokens are masked BERT-style, and masked positions receive global attention. Pretraining ran for an extra 25k steps on Longformer-base via HuggingFace, taking about 8 days on 8 RTX8000 GPUs.
  • Evaluation: Intrinsic evaluation used perplexity. Extrinsic tasks were event and entity cross-document coreference, paper citation recommendation, plagiarism detection and multi-hop QA. Baselines were Longformer, Local CDLM, Rand CDLM and Prefix CDLM.
  • Attention analysis: On positive coreference pairs, CDLM's mean percentile rank was 72.1% for events and 70.3% for entities. Plain Longformer scored 61.9% and 59.7%. This suggests global-attention pretraining implicitly encodes cross-document alignment.
  • Availability and future work: Code and models are released at github.com/aviclu/CDLM. The authors list larger models and cross-document seq2seq models as future work.
