CompassVerifier: A Unified and Robust Verifier for LLMs Evaluation and Outcome Reward

Paper · 2025 · Shudong Liu, Hongwei Liu, Junnan Liu et al.

Summary

Checking whether an LLM's free-form output matches a reference answer is central to benchmarking and to reward signals in RL. Current practice relies on regex or tool-based matching, or on prompting general LLMs. Both need constant per-task tuning and break on unusual outputs. No strong benchmark exists for comparing verifiers. The authors address both gaps. First, they built VerifierBench. Using OpenCompass, they gathered over a million responses from more than 50 models on 15 datasets. These were filtered through multi-model and multi-prompt voting, followed by expert annotation, and recurring error patterns were catalogued. Second, they trained CompassVerifier, a family of lightweight verifiers. Training data combines the VerifierBench training split, synthetic examples of equivalent formulas, and samples targeting observed hallucination failures. The models label answers as correct, incorrect, or invalid across math, knowledge, science, and reasoning. They beat general LLMs and earlier verifiers such as xVerify, and they stay robust out of distribution. Used as a GRPO reward model, they give better RL results than Math-Verify. This offers a reusable, cheaper alternative to hand-crafted evaluation rules.

Key points

  • VerifierBench data: 1,325,293 collected samples covering knowledge, mathematics, science, and general reasoning. Answer types include multiple-choice, formulas, short text, multi-subproblem, and sequence answers. Labels are A (correct), B (incorrect), and C (invalid, e.g., truncated or repetitive output).
  • CompassVerifier training data: three sources:
    • the filtered VerifierBench training set, with easy samples removed;
    • formula-equivalence data generated with DeepSeek-V3;
    • hallucination-targeted synthetic samples.
  • Model sizes: CompassVerifier-3B, -7B, and -32B, compared against Qwen2.5-Instruct models, DeepSeek-V3, xVerify, and Tencent-Qwen2.5-7B-RLVR.
  • Robustness: under VerifyBench's own prompt (a harder OOD setting), CompassVerifier still scores above 86. xVerify and Tencent-Qwen2.5-7B-RLVR fail to follow the instructions.
  • Reward modeling: in GRPO training on Open-S1, CompassVerifier rewards beat Math-Verify and general-LLM verifiers and speed up convergence.
  • Availability: code and data are released at github.com/open-compass/CompassVerifier.
  • Limitation: the approach checks only final answers, not reasoning steps.
