Baichuan Alignment Technical Report
Paper · 2024 · Mingan Lin, Fan Yang, Yanjun Shen et al.
Summary
Alignment methods for large language models are usually kept proprietary or described only in fragments. This technical report from Baichuan Inc. and Peking University sets out the full alignment pipeline behind the Baichuan models. The pipeline has three stages. A Prompt Augmentation System (PAS) automatically rewrites user queries into clearer instructions, Supervised Fine-Tuning (SFT) teaches dialogue on large, diverse, high-quality data, and Preference Alignment brings outputs closer to human preferences. The report covers optimization, data, targeted skills (instruction following, math, reasoning, code, tool use) and evaluation. On the optimization side, it describes a reward model that combines a pairwise ranking objective with absolute-score regression, and RL trained with PPO and GRPO. The same recipe produced the internal Baichuan-Instruct model and two models built on open bases, Qwen2-Nova-72B and Llama3-PBM-Nova-70B. Both open-base models beat their official instruct counterparts on almost every benchmark. The work is useful as a rare end-to-end industrial alignment recipe that transfers across base models.
Key points
- Reward model. It adds a pointwise MSE term to the Bradley-Terry loss so that it also fits normalized, annotated absolute scores, which reduces overfitting and reward hacking. For open preference data without absolute scores (hh-rlhf, SHP), the extra term is turned off (α = 0).
- Training settings.
- SFT uses a learning rate of 1×10⁻⁵, 2–6 epochs and sample packing.
- In RL, the PTX loss is a KL divergence to the original model, computed over the reference model's top-500 logits.
- GRPO samples 3 responses per prompt.
- User-experience gains. Baichuan-Instruct improves by 17–28% across core skills, including +28% in math and +23% in reasoning.
- Llama3-PBM-Nova-70B. Its ArenaHard score rises from 46.6 to 74.5 (about a 60% relative gain), and the model is released on Hugging Face (PKU-Baichuan-MLSystemLab).
- Custom benchmarks. The authors introduce CFBench, SysBench and FB-Bench.
- On SysBench, Baichuan-Instruct reaches a total CSR of 80.8% (third place) and ranks first on Role constraints with 95.2%.
- On FB-Bench, it averages 61.48 and is relatively strong at keeping correct answers under misleading feedback.
