A Survey of Post-Training Scaling in Large Language Models
Paper · 2025 · Hanyu Lai, Xiao Liu, Junjie Gao et al.
Summary
Pre-training scaling, which ties loss to parameter count and token volume, is reaching its limits. High-quality web text is running out, synthetic corpora have unproven value at scale, and the returns on ever-larger compute budgets look doubtful. This survey, by authors from Tsinghua University and Zhipu AI, argues that alignment-stage training offers a second scaling axis. That stage has historically used a tiny share of total compute. Drawing on signals such as OpenAI o1, the authors sort the literature into three families: SFT (fine-tuning with supervision), RLxF (reinforcement learning that relies on "X" feedback), and TTC (compute spent at test time). Within each family, they separate conventional techniques from variants that can grow with more data or computation, and they weigh the strengths and weaknesses of both. The paper also reviews uses in mathematics, coding, and autonomous agents, and it lists open problems. Its value is a structured map that helps researchers decide where extra resources beyond pre-training are most likely to pay off.
Key points
- Post-training has typically consumed under 1% of overall LLM training compute, so it is framed as an underused place to scale.
- A taxonomy tree (Figure 2) divides each of SFT, RLxF, and TTC into common and scalable methods:
- SFT: human labeling and LLM distillation versus Evol-Instruct, Self-Instruct, STaR, SPIN, and self-refinement.
- RL: DPO and reward modeling versus RLAIF, environment feedback (DigiRL), and Self-Rewarding.
- TTC: CoT versus Self-Consistency, ToT, ReST-MCTS*, Many-Shot ICL, and Reflexion.
- RL methods are grouped by where the reward signal comes from (human, synthetic, environment, or self). TTC methods are grouped by what the extra computation targets and how it is spent.
- In agent applications, DigiRL performs strongly on the AITW benchmark, while AgentQ pairs MCTS with DPO.
- Open challenges include:
- weak theoretical grounding;
- synthetic-data risks such as model collapse and limited diversity;
- continual learning and the alignment tax;
- active self-directed data discovery;
- superalignment and weak-to-strong generalization;
- benchmark leakage and saturation.
