Benchmarking LLaMA-3 on Arabic Language Generation Tasks
Paper · 2024 · Md Tawkat Islam Khondaker, Numaan Naeem, Fatimah Khan et al.
Summary
This study asks how well the strongest open-weight model of its time, LLaMA-3-70B, generates Arabic text, a question that earlier evaluations had left open. The authors draw 20 generation tasks, grouped into 10 clusters, from the Dolphin benchmark. The clusters include machine translation (MSA, dialects, Arabizi), code-switched translation, summarization, news title generation, question answering, diacritization and transliteration. They prompt LLaMA-3-70B in zero- and few-shot settings with one prompt template shared across systems. They compare it with ChatGPT, using ChatGPT scores reported earlier by Khondaker et al. (2023), and with smaller Arabic-specific finetuned models. LLaMA-3-70B trails ChatGPT on both Modern Standard Arabic and dialects. Both large models are beaten by the compact dedicated Arabic models. A tokenizer fertility analysis suggests one cause: LLaMA-3 segments Arabic far better than LLaMA-2 but still worse than AraT5. The results suggest that Arabic-focused open LLMs, trained with more Arabic pretraining and instruction data, are still needed.
Key points
- The benchmark has 20 Arabic NLG tasks in 10 clusters, all taken from Dolphin (Nagoudi et al., 2023).
- Code-switching evaluation is zero-shot and uses two sets of 300 items each:
- Arabic–French tweets from Algeria, Morocco and Tunisia.
- Arabic–English posts from Egypt, Jordan and Palestine.
- Tokenizer fertility, measured as average subwords per word following Rust et al. (2020), is:
- LLaMA-3: 2.24
- LLaMA-2: 5.07
- AraT5: 1.25
- In k-shot BLEU for MSA and five dialects into English, ChatGPT generally beats LLaMA-3-70B. Adding more shots does not reliably help LLaMA-3-70B.
- Other open models (AceGPT-7B, jais-13B, gemma-7B) are not evaluated. The ChatGPT numbers come from an earlier study and may drift as that model is updated.
Interesting ideas
- I1. Tokenizer fertility (subword pieces per word) is a cheap, model-agnostic check of how well a vocabulary fits a language, and it can explain weak downstream scores before any task is run
- I2. The authors keep one prompt template fixed for every compared model and accept a possibly lower score in exchange for a fair comparison
- I3. They report results as curves over the number of in-context examples rather than a single setting, which reveals that more shots can fail to help and that results depend on shot order
- I4. A small specialist finetuned model is kept as a reference point, and it shows that sheer scale did not win on these tasks
- I5. Results are split by language variety (standard, regional dialects, code-switched, romanized) instead of being pooled into one score
For Mova
How these ideas could serve Mova, our small open language model — its files, stages and tests:
- I1 (tokens): Compute fertility of the gparse transformer's subword vocabulary over UD English treebank words, broken down by genre. High-fertility regions would point to where parsing errors are likely to cluster.
- I2 (learn): When ranking LLM teacher tiers, give every teacher an identical prompt, so that differences in silver-label agreement reflect the model rather than prompt tuning.
- I3 (learn): Sweep shot counts and shuffle shot order as a negative control for few-shot teacher prompts. Treat labels that flip under reordering as unreliable silver data.
- I4 (answer): Always score the explainable pipeline alongside an LLM on school tests and fable QA. Where the compact specialised route matches or beats the LLM, that justifies keeping it.
- I5 (tree): Report LAS separately per register and genre, such as web text, conversation and fiction, so that weaknesses tied to dialect or style are not hidden by a strong newswire average.
