WebEvolver: Enhancing Web Agent Self-Improvement with Co-evolving World Model

Paper · 2025 · Tianqing Fang, Hongming Zhang, Zhisong Zhang et al.

Summary

Web agents that improve by fine-tuning on their own sampled trajectories tend to plateau. They explore too little, and they underuse the web knowledge already present in pretrained LLMs. WebEvolver tackles this by training a world model alongside the agent. The world model is an LLM fine-tuned on collected interaction data to predict the next page observation (an accessibility tree) from the current observation and an action. It has two jobs. During training, it acts as a simulated web server, producing synthetic multi-step trajectories that enlarge the agent's fine-tuning data. During inference, it supports World-Model Look-Ahead (WMLA): the agent proposes several candidate actions, the world model imagines their outcomes, and an LLM scorer chooses the best one. The approach was evaluated on live web benchmarks (Mind2Web-Live, WebVoyager) and on out-of-domain tests (GAIA-web, SimpleQA). It outperformed the self-evolving baseline OpenWebVoyager by about 10% without distilling from stronger closed models. This suggests that learned simulators can make agent self-training both cheaper and more diverse.

Key points

  • Training setup: The method uses iterative SFT on filtered trajectories rather than end-to-end RL. The world model synthesizes trajectories up to depth 7, and adding this synthetic data gave roughly 4% extra improvement over real-interaction self-training alone.
  • WMLA tuning: WMLA works best at look-ahead depth d = 2 and branching factor k = 3. On WebVoyager, k = 2/3/5 scored 48.62/51.37/50.73.
  • World-model quality: GPT-4o rated the simulated pages on structure, similarity and overall quality. Scores fell below 0.50 beyond depth 2, which matches the diminishing gains of deeper look-ahead.
  • Out-of-domain results: Using Bing, which never appeared in the training data:
    • GAIA-web Level 1 rose from 19.2 (Llama 3.3-70b) to 30.7 with WebEvolver and 34.6 with WMLA.
    • SimpleQA rose from 36 to 48 and then 58.
    • GAIA Level 2 improved only modestly, reaching 17.2.
  • Availability: Code is released at github.com/Tencent/SelfEvolvingAgent.
