Whose Boat Does it Float? Improving Personalization in Preference Tuning via Inferred User Personas
Paper · 2025 · Nishant Balepur, Vishakh Padmakumar, Fumeng Yang et al.
Summary
Standard preference datasets record which of two responses annotators favored but not why. LLMs tuned on them therefore learn one majority notion of quality and adapt poorly when a user states specific needs. The authors treat this as an abductive problem. Given a prompt and a response pair, an LLM writes a short persona describing a user who would favor one answer over the other, for both the chosen and the rejected response.
This Persona Inference (PI) step is tested with nine Claude, GPT and LLaMA-3.1 models on four datasets covering QA, dialogue and education. The inferred personas are then added to the data for Persona Tailoring (PT), in which LLaMA-8B learns to produce answers conditioned on the prompt plus a persona, via few-shot prompting, SFT or DPO.
PI personas turn out to be accurate, and PT improves personalization under every strategy. The gains also carry over to personas written by real users. The work shows that rejected responses often reflect legitimate but less common needs, which makes them a harder and valuable test bed for personalization.
Key points
- PI datasets: BeaverTails (safe split), Stanford Human Preferences (SHP), Anthropic HHH (single-turn) and Mnemonic. Personas avoid protected attributes and follow a fixed "The user is … and prefers …" template.
- LLaMA-405B reaches 91% PI accuracy as judged by GPT-4o, and this judge agrees with humans 90% of the time. Humans see rejected-response personas as plausible but fitting fewer users.
- PT DPO is the strongest variant. On personas derived from rejected responses, it beats plain DPO by an average of 66% in personalization.
- In a user study, eight participants wrote 144 personas and preferred PT DPO outputs over DPO ones.
- The authors note limitations: PI uses a single example per persona, irrelevant personas degrade outputs, and the method carries risks of harmful personas and confirmation bias. The persona-augmented datasets and code are released at github.com/Pinafore/alignment-personalization.
