Modular Pluralism: Pluralistic Alignment via Multi-LLM Collaboration
Paper · 2024 · Shangbin Feng, Taylor Sorensen, Yuhan Liu et al.
Summary
Standard alignment tends to push LLMs toward one averaged human preference. This leaves the diverse values of different cultures, demographics and communities poorly represented. Existing fixes usually require retraining or weight access, so they cannot be used with proprietary black-box models. Patching a newly noticed representation gap is also costly. The authors propose MODULAR PLURALISM, which attaches a pool of small "community LMs" to a base LLM. Each community LM is fine-tuned on corpora from one community. The two model types collaborate differently depending on the goal:
- Overton: the LLM summarizes the community LMs' comments into one answer.
- Steerable: the LLM picks the comment that best fits a requested attribute.
- Distributional: the LLM produces answer distributions conditioned on each comment and mixes them by population weights.
Across six LLMs, four datasets and six tasks, the framework beats vanilla, prompting and mixture-of-experts baselines on all three objectives. It only needs model outputs and token probabilities. An underrepresented group can be covered by plugging in a new community LM, which makes pluralism cheaper to add.
Key points
- Community LMs start from Mistral-7B-Instruct-v0.2 and are trained with LoRA. By default there are six, built from the left/center/right news and social media corpora of Feng et al. (2023).
- The method was tested with LLaMA2 (7B/13B/70B), LLaMA3-8B, Gemma-7B and ChatGPT, in both unaligned and aligned versions.
- Reported gains:
- about 68.5% average improvement in value coverage for Overton pluralism;
- better steerability toward values in 26.6% of cases and toward demographic attributes in 10.4%;
- at least 10.9% better match to distributions on moral scenarios and global opinions.
- On the steerable Value Kaleidoscope (VK) task, the aligned-LLM variant leads in all settings. Its margin over the runner-up reaches 23.8% balanced accuracy and 21.8% Macro-F1.
- Code and data are released at github.com/BunsenFeng/modular_pluralism.
