Sparse Logit Sampling: Accelerating Knowledge Distillation in LLMs

Paper · 2025 · Anshumann, Mohd Abbas Zaidi, Akhil Kedia et al.

Summary

Offline knowledge distillation for LLM pre-training means running the teacher once, caching its outputs, and reusing them to train many students. Its main obstacle is storage. Saving full output distributions over a modern vocabulary is impractical: the authors estimate 128 PetaBytes per 1T tokens for Llama3. The usual workaround keeps only the Top-K teacher probabilities. The authors show, through proofs and experiments, that this gives the student a biased picture of the teacher. It inflates the probabilities of the top tokens and hides the tail of the distribution, so students become overconfident and poorly calibrated.

The authors first test partial remedies: label smoothing, a "ghost token", and moving the leftover mass onto the ground-truth token. They then propose Random Sampling Knowledge Distillation, which uses importance sampling to draw tokens from the teacher distribution. This gives unbiased estimates of the teacher distribution, and the gradients match full distillation in expectation.

In experiments with students from 300M to 3B, the method performs close to FullKD while storing only a small fraction of the logits. This makes distillation-based pre-training affordable on modest clusters.

Key points

  • Vanilla Top-K KD with fewer than about 25 tokens yields a worse student than plain CE training. Top-K students become more miscalibrated (higher ECE) as K shrinks, while CE and FullKD students stay well calibrated.
  • Training overhead is under 10% compared with cross-entropy training. Storage needs drop from roughly 6400 logits per token (the Top-5% approach of Raman et al.) to about 12, or around 0.01% of the teacher logits.
  • The method works with other architectures: a Qwen2.5-0.5B-style student improved over CE in LM loss (2.99 → 2.95) and speculative acceptance rate (58.9% → 60.0%).
  • In the loss ablation, forward KL-Divergence was the best objective (LM loss 2.75). It beat reverse KLD, MSE, and L1.
  • The contemporaneous Gemma3 work uses a very similar sampling-based distillation for models up to 27B and 14T tokens, which suggests the approach scales. The authors' own experiments stop at 3B parameters and 100B tokens.
