Critique-out-Loud Reward Models
Paper · 2024 · Zachary Ankner, Mansheej Paul, Brandon Cui et al.
Summary
Standard reward models for RLHF score a prompt–response pair with a single classifier pass and ignore the generative abilities of the underlying LLM, so any judgment of quality stays implicit. Ankner et al. propose Critique-out-Loud (CLoud) reward models. These keep the language modeling head, first write a natural-language critique of the response, and then predict a scalar score that takes into account the original prompt, the candidate response, and the critique just generated. Training has three stages. The model is first fine-tuned on oracle critiques produced by Llama-3.1-405B-Instruct. Those critiques are then swapped for the model's own generations. Finally, a reward head is trained with a Bradley-Terry preference loss combined with a weighted critique SFT loss. Built on Llama-3-8B and 70B, CLoud models outperform classic reward models on RewardBench and give better Best-of-N selection on ArenaHard. The approach matters because it links conventional reward modeling with LLM-as-a-Judge. It also yields readable explanations and allows extra inference compute to be spent on scoring.
Key points
- On RewardBench, pairwise preference accuracy improves over classic reward models by 4.65 points for the 8B base model and 5.84 points for the 70B base model.
- When CLoud is used as the scorer for Best-of-N, ArenaHard win rates show a Pareto improvement.
- An ablation shows that on-policy training, where the reward head learns from self-generated rather than oracle critiques, is essential for good results.
- Self-consistency samples several critiques and averages the resulting rewards. It adds up to 0.70 points (8B) and 0.49 points (70B) on reasoning tasks.
- The code is released at github.com/zankner/CLoud. The authors are affiliated with Databricks, MIT and UC San Diego.
