Summary
LLMs can generate large amounts of synthetic training data, but making that data diverse is much harder. One synthesis prompt yields essentially one output, so variety has to come from varying the prompts. Existing ways of doing that either depend on a small seed corpus or on hand-made lists of topics, and neither scales well. The authors from Tencent AI Lab add a persona description to any data-generation prompt, so the LLM writes from that person's point of view. To use this at scale, they built Persona Hub: about 1 billion personas extracted automatically from web text. One method, Text-to-Persona, infers who would likely read or write a given text. The other, Persona-to-Persona, expands the set through related people. They used the personas to generate math and logic problems, user instructions, knowledge-heavy texts, game NPCs and tool (function) definitions. A 7B model trained on persona-generated math data scored about 65% on MATH, roughly matching gpt-4-turbo-preview. The method gives a cheap, general way to get diverse data. It also means a strong LLM's capabilities could be extracted and copied.
Key points
- Persona Hub holds about 1B personas (about 13% of the world's population), roughly 10^10 tokens in total. The authors present it as a 10,000× condensed form of the knowledge in about 10^14 tokens of public web text.
- The public release on GitHub (tencent-ailab/persona-hub) contains 200,000 personas and sample outputs: 50k math problems, 50k logical reasoning problems, 50k instructions, 10k knowledge-rich texts, 10k game NPCs and 5k tools. A February 2025 update added 370M expert personas.
- The approach should work with most LLMs; the experiments mainly used GPT-4, Llama-3 and Qwen.
- Headline result: a 7B model reached about 65% on MATH using persona-driven synthetic problems.
- Limitations and risks: persona descriptions are coarse and LLMs hallucinate. The authors also warn of training-data "dumping", replication of proprietary models, and synthetic text that is harder to tell apart from human writing. Planned work includes richer persona descriptions and multimodal data.
