AT\texttwosuperiorPO: Agentic Turn-based Policy Optimization via Tree Search
Paper · 2026 · Zefang Zong, Dingwei Chen, Yang Li et al.
Summary
AT²PO is a reinforcement learning method for LLM agents that solve tasks over several turns, alternating reasoning with tool calls such as search. The authors name three weaknesses in current agentic RL. Rollouts lack diversity under a fixed budget. Reward arrives only when a trajectory ends. Policy objectives borrowed from RLVR, which use token-level (GRPO) or sequence-level (GSPO) ratios, ignore the turn structure.
Their framework builds rollouts as a tree whose nodes are whole turns:
- Entropy-Guided Tree Expansion grows new branches from the turns where the policy is least certain.
- Turn-wise Credit Assignment passes the final outcome reward back up the tree, so each turn gets its own value, which serves as its advantage.
- ATPO applies importance sampling and clipping per turn. It does not depend on the tree and can be added to other multi-turn pipelines.
On seven search-agent QA benchmarks, the method beats the strongest baseline by up to 1.84 points on average. Its training entropy also stays more stable. This makes it a useful recipe for training tool-using agents from sparse rewards.
Key points
- Ablation on Qwen3-4B (multi-hop average):
- ReAct baseline: 30.01
- Random tree search with GRPO loss: 45.42
- Switching to the ATPO loss: 47.75
- Adding entropy-guided expansion: 48.33
- Adding turn-wise credit assignment (full AT²PO): 48.81
- Credit assignment variants: Using the node value directly as the advantage, with child-weighted aggregation, works best (48.81). The TreeRL-style combined local-plus-global advantage performs worst (44.18).
- Training dynamics: GRPO's entropy collapses early in training. AEPO's entropy slowly drifts upward over long runs. AT²PO's entropy remains the most stable.
- Validation data: The multi-hop set has 22,523 instances averaging 3.71 turns. The single-hop set has 29,190 instances averaging 2.86 turns. AT²PO is state of the art on all multi-hop settings.
- Limitation: Expanding the tree takes sequential iterations, so it costs more compute than linear rollouts.
