MMSearch-R1: Incentivizing LMMs to Search

Paper · 2026 · Jinming Wu, Zihao Deng, Wei Li et al.

Summary

Large multimodal models (LMMs) often fail on visual questions that need long-tail or recent facts. Existing fixes have drawbacks. RAG pipelines retrieve for every query from a fixed corpus, and prompt-based search agents never learn tool use through training. MMSearch-R1 addresses this with an end-to-end reinforcement learning setup that teaches an LMM three things: when to search, what to search for, and how to use the results.

During GRPO rollouts, the model can call two live Internet tools: an image search and a text search. The reward combines answer correctness with a penalty for unnecessary searching. Training data is a multimodal search VQA set built semi-automatically by estimating what the model already knows. From it, the authors curate a subset that balances questions needing search with questions answerable without it.

The 7B model beats RAG baselines of the same size and roughly matches a 32B RAG system while issuing over 30% fewer search calls. This shows that RL can produce efficient, on-demand search behaviour in multimodal agents.

Key points

  • Training method: GRPO is applied directly to the LMM, with no cold-start supervised stage. Retrieved web content is masked out of the loss, so it does not affect gradients.
  • Search tools:
    • Image search via SerpApi returns the top-5 matching pages as thumbnails with titles.
    • Text search chains SerpApi, Jina Reader and a Qwen3-32B summarizer over the top-5 URLs.
  • Reward design: exact string match gives an accuracy score of 1 or 0. Correct answers that relied on search receive a penalty factor, and a separate format score is added.
  • Main result: MMSearch-R1-7B performs competitively with a 32B RAG-based model while making over 30% fewer search calls.
  • Additional behaviours reported in the appendices:
    • The model resolves conflicting evidence.
    • It stays fairly robust to noisy search results.
    • It writes more fact-rich image captions.
    • It shows lower end-to-end latency than standard RAG at similar token cost.
