CE-GPPO: Coordinating Entropy via Gradient-Preserving Clipping Policy Optimization in Reinforcement Learning

Paper · 2026 · Zhenpeng Su, Leiyu Pan, Minxuan Lv et al.

Summary

The paper tackles unstable policy entropy when large language models are trained with RL for reasoning. PPO-style methods, including GRPO and DAPO, clip the importance sampling ratio, and this silently drops gradients from low-probability tokens. The authors split tokens by advantage sign and probability. They argue that clipped tokens matter for entropy in opposite ways: positive-advantage low-probability ones drive exploration, while negative-advantage low-probability ones drive exploitation. Losing the first group leads to entropy collapse, and losing the second leads to entropy explosion.

Their method, CE-GPPO, uses a stop-gradient trick to bring back gradients from tokens outside the clipping interval. Two coefficients, β1 and β2, scale these gradients separately for each side of the interval, which keeps updates bounded and controls the exploration–exploitation balance. The authors give a theoretical argument that the policy still stays close to the old policy. On mathematical reasoning benchmarks across several model sizes, CE-GPPO beats GRPO, DAPO, CISPO and GSPO while keeping entropy high but stable. This matters because entropy becomes a tunable quantity rather than a training failure mode.

Key points

  • The analysis separates tokens into four groups: PA&HP, NA&LP, PA&LP and NA&HP. Clipped low-probability tokens, PA&LP and NA&LP, are identified as the key drivers of entropy changes.
  • Preliminary runs on DeepSeek-R1-Distill-Qwen-7B with math and code data showed that tokens outside the clip range are mostly low-probability ones.
  • Without any mitigation, GRPO's entropy falls to about 0.06. An entropy bonus with α = 0.001 ends at a similar level, while α = 0.003 causes entropy explosion and worse accuracy. DAPO's clip-higher shows an entropy rebound from roughly step 300.
  • β1 = 0.5, β2 = 1 works well across models. Giving more weight to PA&LP gradients than to NA&LP gradients helps keep exploration alive.
  • Changing the setting mid-training (β1 = 0 → 0.5 at step 585) improved AIME 2025 Avg@32. This supports exploring early and exploiting later, in line with Kimi K2.
