From Attenuation to Attention: Variational Information Flow Manipulation for Fine-Grained Visual Perception

Paper · 2026 · Jilong Zhu and Yang Feng

Summary

Multimodal LLMs such as LLaVA handle general scene understanding well but often miss tiny objects and subtle visual relations. The authors trace this to what they call Visual Attenuation. Visual tokens get substantial attention in shallow layers, but in deep layers their share drops sharply and becomes nearly uniform, so the model focuses on the right region mid-network and then loses that focus. Input-side fixes like higher resolution or cropping cannot undo this internal loss.

The proposed Variational Information Flow (VIF) framework is a plug-and-play module built on a Conditional Variational Autoencoder:

  • Training: a posterior attention distribution conditioned on the question and the ground-truth answer is aligned with a prior conditioned on the question alone. This lets the prior learn answer-relevant visual saliency for use at inference.
  • Attention model: attention is represented as a Gaussian Mixture Model, with a sparsity penalty.
  • Injection: maps learned in middle layers are injected into deep layers.

On LLaVA-v1.5, VIF improves general VQA, fine-grained perception and grounding benchmarks, with the largest gains on high-resolution tasks. The work shifts the focus from enriching inputs to repairing how visual information propagates inside the model.

Key points

  • Default results: with LLaVA-v1.5 as the baseline, the default VIF configuration improves:
    • HR-Bench (4K): 36.1 → 44.8
    • Vstar: 45.0 → 50.8
    • SEED-I: 67.2 → 70.8
    • TextVQA: 58.1 → 59.9
    • GQA: 61.9 → 62.8
  • Layer mapping: the default extracts attention from layers 11, 13, 15 and 17 and injects it into layers 25, 27, 29 and 31. A 5-pair mapping gave only marginal extra gains at higher cost.
  • Ablations:
    • Without sparsity regularization, HR-Bench (4K) falls to 36.8 and REC (val) drops from 34.3 to 29.6.
    • Without answer-posterior supervision, SEED-I drops by about 1.6 points.
  • Attention focus: across 500 sampled instances, visual attention entropy in deep layers falls from 5.3561 to 3.2335, indicating sharper focus.
  • Code and limitations: code is available at github.com/ictnlp/VIF. The module adds inference overhead, and it cannot recover detail already lost by the frozen encoder (e.g., CLIP).
