MegaPairs: Massive Data Synthesis for Universal Multimodal Retrieval
Paper · 2025 · Junjie Zhou, Yongping Xiong, Zheng Liu et al.
Summary
Universal multimodal retrievers, which must handle tasks such as composed image retrieval (CIR) beyond plain text-to-image matching, are held back by a shortage of instruction-tuning data. Existing synthetic resources like MagicLens rely on images that appear together on the same webpage. That source is limited in size, often noisy or repetitive, and the resulting data has not been released. MegaPairs takes a different route. It mines related image pairs from a general open-domain corpus (Recap-Datacomp-1B) using three different similarity models. Open-source models then describe how each pair is related and turn that description into retrieval instructions. Other retrieved images are kept as hard negatives. The pipeline yielded over 26 million triplets, which were used to train MMRet retrievers in several sizes. These models achieve state-of-the-art zero-shot results on four CIR benchmarks and the best overall score on MMEB, and they keep improving after fine-tuning. Because the method needs only public images and open models, it is cheap to scale, and the code, data and models are all openly available.
Key points
- Pair mining: related pairs are found with three similarity signals:
- CLIP image encoder, for semantic similarity;
- DINOv2, for visual-pattern similarity;
- CLIP text encoder, for caption similarity.
- Annotation: InternVL2-26B summarizes how two images relate, and Llama-3-8B writes open-ended instructions from that summary.
- Data efficiency: training on just 500K MegaPairs samples (under 2% of the data) beats MagicLens-B trained on 36.7M pairs with the same CLIP-base backbone. Performance keeps rising as training data grows to 26M.
- Hard negatives: in a 1M-scale ablation, mined hard negatives raise CIRCO mAP@5 from 10.1 (no negatives) to 32.3. Using all three pairing strategies together beats any single strategy or any pair of strategies.
- Evaluation and release: MMRet is evaluated zero-shot on CIRCO, CIRR, FashionIQ, GeneCIS and the 36 MMEB datasets. Resources are released at github.com/VectorSpaceLab/MegaPairs.
