Transfusion: Predict the Next Token and Diffuse Images with One Multi-Modal Model
Paper · 2024 · Chunting Zhou, Lili Yu, Arun Babu et al.
Summary
Generative models usually handle text with next-token prediction and images with diffusion. Combining the two typically means either attaching a separate diffusion model to a language model or quantizing images into discrete tokens, which loses information. Transfusion trains a single transformer on mixed text–image sequences with two objectives. Text tokens get the standard LM loss, and VAE-latent image patches get a DDPM noise-prediction loss. Attention is causal across the sequence but bidirectional within each image. The authors pretrained models of up to 7B parameters from scratch on 50% text and 50% image data and derived scaling laws. In controlled comparisons, Transfusion scales better than the Chameleon-style discrete-token approach for every modality pairing, including text-only. A 7B model trained on 2T tokens produces images comparable to dedicated diffusion models and text comparable to Llama 1. This suggests one end-to-end model can handle both kinds of data without sacrificing either.
Key points
- Efficiency vs. Chameleon:
- Text-to-image: Transfusion surpasses Chameleon with under one third of the compute, and reaches about 2× lower FID at equal FLOPs.
- Image-to-text: it matches Chameleon at 21.8% of the FLOPs.
- Text perplexity: it reaches parity at roughly 50–60% of Chameleon's FLOPs.
- Ablations:
- Bidirectional attention within an image matters, and switching to causal attention degrades text-to-image results.
- Adding U-Net down/up blocks (0.27B parameters) lets each image be compressed to as few as 16 patches with modest quality loss, potentially cutting serving cost by up to 64×.
- Flagship model: 7B parameters trained on 1T text tokens plus about 5 epochs over 692M image–caption pairs (about 1T further patches/tokens).
- On GenEval it beats DALL-E 2 and SDXL and is close to DeepFloyd.
- It trails SD 3, which used synthetic captions, whereas Transfusion was trained only on natural data.
- Image editing: Fine-tuning the 7B model on just 8k public editing examples yields plausible instruction-following edits on the EmuEdit test set. This indicates the model can adapt to an image-to-image setting not covered in pretraining.
