ScaleBox: Enabling High-Fidelity and Scalable Code Verification for Large Language Models

Paper · 2026 · Jiasheng Zheng, Xin Zheng, Boxi Cao et al.

Summary

Code sandboxes provide the execution-based feedback used to train and evaluate code-generating LLMs, including Reinforcement Learning from Verifiable Rewards (RLVR). Current sandboxes have two weaknesses. First, they mostly compare outputs by exact string match, so they reject correct programs whenever several outputs are valid or floating-point tolerance applies. Second, their scheduling is coarse, so host CPUs sit idle while accelerators do the heavy work. ScaleBox is a distributed sandbox built on SandboxFusion that addresses both problems. It uses LLMs to automatically synthesize and manage special judges and verifies all test types through one unified framework. It also runs code in parallel at both the instance and individual test-case level, spreads work across nodes behind an NGINX load balancer, and is controlled from a web dashboard. A configuration-driven suite supports reproducible benchmarking. The synthesized judges are reliable, execution is faster than verl's built-in path, and RL training of Qwen3-8B with ScaleBox rewards beats exact-match rewards on LiveCodeBench. This matters because noisy rewards distort learning signals in large-scale code RL.

Key points

  • Preliminary study: On 34,757 Python problems from the PrimeIntellect dataset, 14.57% need a special judge. Of these, 78.26% allow multiple valid outputs and 21.74% involve floating-point tolerance. Exact match fails 59.01% of their correct reference solutions.

  • Judge quality: On AetherCode, the synthesized judges reach over 84% per-solution precision. Every tested generator model achieves TPR ≥ 90% and TNR ≥ 84%. Claude-3.7-Sonnet scores best, with 96.3% TPR and 88.5% TNR.

  • Efficiency: ScaleBox runs 59% faster than verl's native execution, and throughput keeps growing as nodes are added.

  • RL setup: Qwen3-8B (non-thinking) is trained with GRPO in verl on 26K PrimeIntellect problems. DeepSeek-V3.2 flagged 2.8K of these as needing special judges. In 1.2K of them, reference solutions fail exact match but pass the synthesized judges.

  • RL results (Pass@1):

The base model scores 25.09 on LCB-v5. Training curves are also more stable with special judges.
