MAESTRO: Meta-learning Adaptive Estimation of Scalarization Trade-offs for Reward Optimization
Paper · 2026 · Yang Zhao, Hepeng Wang, Xiao Ding et al.
Summary
GRPO aligns LLMs well when answers can be checked automatically, as in math or code. Open-ended generation has no such check, and its goals often conflict, for example creativity versus factuality. Existing fixes either rely on costly LLM judges or combine cheap heuristic rewards (perplexity, entropy, format) using one fixed weighting for every prompt.
MAESTRO replaces that fixed weighting with a learned, per-instance choice, framed as a contextual bandit:
- Conductor: a small linear head reads the policy's last-layer hidden state for the prompt and response. It then samples which reward mix to emphasize.
- Bi-level training: the policy is updated with standard GRPO. The Conductor is updated separately from buffered GRPO group-relative advantages, which serve as its meta-reward.
- Two time scales: keeping these updates asynchronous makes meta-credit assignment stable.
Experiments used Qwen3-8B and Llama-3.1-8B-Instruct on seven open-domain benchmarks. MAESTRO beat single-reward baselines, static multi-objective weighting and Nover, while keeping GRPO's efficiency. This suggests rule-style RL can extend to open-domain tasks without costly judge models.
Key points
- The Conductor is a softmax linear projection over the terminal hidden state. Its overhead is negligible, and it chooses among five reward types, including format, perplexity and entropy rewards.
- In some settings, training throughput rose by up to 20.1% because the model produced less redundant generation.
- Using the last layer as Conductor input worked best on Qwen3-8B. On SS-GEN it scored 92.52 (last) versus 91.30 (first) and 88.80 (middle). On ToMBench it scored 71.88, 69.90 and 64.41 respectively.
- Asynchronous Conductor updates clearly beat joint backpropagation through GRPO. On SS-GEN the scores were 92.52 versus 80.71, and on ToMBench 71.88 versus 68.50.
- Limitations: results depend on the quality of the component rewards, and testing was limited to 8B models. Code is available at github.com/zy125413/MAESTRO.
