Bias Fitting to Mitigate Length Bias of Reward Model in RLHF
Paper · 2026 · Kangwen Zhao, Jianfeng Cai, Jinhua Zhu et al.
Summary
Reward models used in RLHF often give higher scores to longer answers whether or not those answers are better. Policies then learn to be verbose, which is a form of reward hacking. Earlier fixes either leave the shape of this bias unspecified (KL regularization, RRM) or assume reward grows linearly with length (length penalty, ODIN, Huang et al.).
The authors propose FiMi-RM, a three-stage pipeline:
- Train an ordinary Bradley-Terry reward model and deliberately leave its length bias in place.
- Fit a small separate model that predicts the biased reward from response length alone. Length is encoded with a positional-encoding-style projection.
- Use this fitted, possibly non-linear curve to remove the length component from the reward while keeping preference modeling intact.
The method was tested on Qwen2.5-7B and Gemma2-9B, with the reward model applied in DPO and Best-of-N. FiMi-RM produced a more balanced length-reward distribution. It also gave higher length-controlled win rates on Alpaca-Eval and shorter outputs than the baselines, without hurting quality. The fitted curve confirms that length bias is not linear, so debiasing methods that model the actual shape of the bias are better motivated.
Key points
- Fitting model: The lightweight fitting model maps response length into a 32-dimensional feature vector, using an encoding inspired by positional encoding. It is trained on the warm-up reward model's outputs.
- DPO on Qwen2.5-7B (Alpaca-Eval): LC-WR rose to 62.17, compared with 58.56 for the vanilla RM and 58.91 for ODIN. Average output length fell to 757 characters, from 1089 for the vanilla RM.
- DPO on Gemma2-9B (Alpaca-Eval): LC-WR was 59.47, compared with 57.35 for the vanilla RM.
- Other benchmarks under DPO:
- MT-bench average: 4.82 vs 4.44 on Qwen, and 3.99 vs 3.53 on Gemma.
- IFEval prompt-level accuracy: 19.0 vs 17.4 on Qwen, and 19.6 vs 18.0 on Gemma.
- Shape of the learned bias: Reward rises roughly linearly with length below about 100 tokens. Above that point the curve flattens and sometimes dips slightly.
