AdaSteer: Your Aligned LLM is Inherently an Adaptive Jailbreak Defender
Paper · 2025 · Weixiang Zhao, Jiahe Guo, Yulin Hu et al.
Summary
Safety-aligned LLMs can still be jailbroken. Activation steering is a training-free defense that pushes hidden states toward refusal, but it applies one fixed strength to every input. That fixed setting under-protects against some attacks and causes more false refusals of harmless requests. AdaSteer makes the steering strength depend on the input.
The authors use difference-in-means to find two directions in activation space:
- Rejection Direction (RD): contrasts refused and complied harmful prompts.
- Harmfulness Direction (HD): contrasts complied harmful prompts with benign ones.
They observe two regularities. Under the Rejection Law (R-Law), attacks sitting further against RD are harder to block and need stronger rejection steering. Under the Harmfulness Law (H-Law), jailbreak inputs lie further toward harmfulness on HD than benign inputs do. An input's position on each axis feeds a logistic regression that sets two coefficients: one strengthens refusal for adversarial inputs, the other pushes benign inputs toward compliance.
Tested on three open models against seven attack types, AdaSteer beats baseline defenses with little loss of utility. This shows that interpretability findings can support practical, real-time safety controls.
Key points
- Steering rule: the hidden state is shifted by λ_r·v_RD + λ_c·v_HD. Both coefficients are predicted per input from its projections on RD and HD (pos_RD, pos_HD).
- Models: LLaMA-3.1-8B-Instruct, Gemma-2-9B-it and Qwen2.5-7B-Instruct.
- Data for directions: standard harmful prompts from AdvBench, TDC2023, Malicious Instruct and JailbreakBench. A small jailbreak development set, disjoint from the test data, is used for tuning.
- Attack difficulty: the average rejection strength needed to make the model refuse varies by attack. Examples include roughly 0.16 for Jailbroken, 0.18 for ReNeLLM, 0.21 for Cipher and 0.22 for AutoDAN.
- Limitations: only mid-sized models were tested, and the method assumes linear steering. Code is available at github.com/MuyuenLP/AdaSteer.
